Search, Verify and Feedback: Towards Next Generation Post-training Paradigm of Foundation Models via Verifier Engineering

Paper · 2024 · Xinyan Guan, Yanjiang Liu, Xinyu Lu et al.

Summary

Foundation models such as LLMs are now so capable that improving them further through large-scale human annotation is becoming expensive and less effective. This position-and-survey paper from the Chinese Information Processing Laboratory (ISCAS) proposes "verifier engineering" as a post-training paradigm in response. Instead of relying on human labels, a model is improved through automated verifiers that check its outputs and return feedback. The authors present this as the next step after feature engineering (classical ML) and data engineering (deep learning).

They formalize the approach as a Goal-Conditioned Markov Decision Process and organize it as a closed loop of three stages:

  • Search: sampling candidate responses.
  • Verify: scoring those candidates with combinations of verifiers.
  • Feedback: shifting the model's output distribution based on the verification results.

Existing techniques, from RLHF to OmegaPRM and Experiential Co-Learning, are classified within this taxonomy. The paper reports no new experiments; its contribution is a unifying framework and a structured literature review. It matters as a conceptual map for designing scalable supervision beyond manual annotation.

Key points

  • Search is split into linear methods (reject sampling, CoT, speculative decoding) and tree methods (beam search, MCTS, ToT, CoT-SC).
  • Verifiers are classified along three axes:
    • Output form: ranking, binary, score, or text (e.g., PairRM, code interpreter, Bradley-Terry RM, LLM-as-a-Judge).
    • Granularity: token-level (value models), thought-level (PRM), or trajectory-level (ORM).
    • Source: self-supervised or supervised by humans or a teacher model.
  • Feedback is either training-based (SFT/KD, DPO/IPO/KTO, PPO) or inference-based. Inference-based methods are either verifier-guided (e.g., Best-of-N) or verifier-aware (e.g., Self-Debug, ReAct).
  • Open challenges include keeping verifiers in sync with the evolving policy and choosing verifier combinations. Others are cross-query generalization without over-generalization, balancing online and offline feedback, and efficiency (e.g., LoRA, vLLM).
  • Resource: a curated reading list is available at github.com/icip-cas/Verifier-Engineering (arXiv:2411.11504, November 2024).
