Symbolic Regression with a Learned Concept Library
Paper · 2024 · Arya Grayeli, Atharva Sehgal, Omar Costilla-Reyes et al.
Summary
Symbolic regression (SR) looks for short mathematical expressions that explain a dataset. Its search space is discrete and grows exponentially, and leading genetic methods such as PySR explore it through random mutation and crossover. The authors propose LaSR, which adds a human-like layer of abstraction. An LLM, queried zero-shot, distills recurring patterns from the best-scoring formulas into a library of natural-language concepts (e.g. "exponential growth/decay"). It then refines those concepts and uses them to steer the generation of new candidates. LLM-driven initialization, mutation and crossover replace PySR's symbolic operations only with a fixed probability p, so ordinary evolutionary exploration is preserved. The method is framed as hierarchical Bayesian inference over both hypotheses and the concept library. On the Feynman Equations benchmark, LaSR recovers 66 of 100 target formulas, compared with 59 for the strongest earlier method. It also beats PySR on synthetic tasks designed to rule out memorized answers. The work suggests that LLM background knowledge can make evolutionary scientific discovery more efficient and more interpretable.
Key points
- LaSR cycles through three phases: concept-guided hypothesis evolution, abstraction of concepts from top hypotheses, and evolution of those concepts into more general forms. Per the paper's diagram, each step runs about 400 expression-search iterations and 3 concept-library iterations.
- On Feynman Equations (100 formulas from the Feynman Lectures in Physics), LaSR solves 66, while the best prior approach solves 59.
- To address possible test-set leakage into the LLM, the authors also evaluate on synthetic benchmarks against PySR, where LaSR wins clearly.
- LaSR is implemented in Julia on top of PySR, with a Python interface and an open-source LLM inference framework. It was published at NeurIPS 2024, with artifacts at trishullab.github.io/lasr-web.
- A case study uses LaSR to find a new LLM scaling law. Stated limitations are:
- the learned concepts are not guaranteed to be correct or mutually consistent;
- the experiments were compute-constrained.
