A Survey of Confidence Estimation and Calibration in Large Language Models
Paper · 2023 · Jiahui Geng, Fengyu Cai, Yuxia Wang et al.
Summary
LLMs often produce fluent but wrong output, so users need to know how much each answer can be trusted. This survey by researchers at MBZUAI and TU Darmstadt reviews confidence estimation (how sure a model is) and calibration (whether stated confidence matches real accuracy). It explains why classic techniques built for discriminative classifiers do not transfer easily to LLMs. Possible outputs grow exponentially with length, different wordings can carry the same meaning, and results depend heavily on prompt choice and example order.
The authors organise the literature into a taxonomy that separates generation tasks from classification tasks. Generation methods are further split into white-box approaches, which need access to logits or hidden states, and black-box approaches, which work only from model outputs. The paper also covers evaluation metrics, practical applications and open problems. It runs no experiments of its own. Its value is a structured map of a fast-growing area, along with a clear point that no shared benchmark currently exists for comparing calibration methods.
Key points
- Metrics reviewed: ECE and its token-level form, plus variants that fix ECE's sensitivity to bin choice: SCE, ACE, classwise ECE and weighted ECE. Ranking-oriented measures such as AUROC and AUARC are also covered.
- Estimation families for generation:
- White-box: logit-based scores (e.g., length-normalised likelihood, SAR, semantic uncertainty) and internal-state probes (e.g., P(True)/P(IK) from Kadavath et al.).
- Black-box: verbalised (linguistic) confidence, consistency across sampled answers, and surrogate models.
- Classification: calibration work mainly targets label and answer-position bias in multiple-choice QA and in-context learning.
- Applications:
- Hallucination detection, using tools such as SelfCheckGPT and SAC3.
- Spotting ambiguous questions and abstaining from answers (selective generation).
- Choosing data for few-shot examples, annotation or retrieval.
- Future directions: cross-domain benchmarks (especially for long-form text), calibration of multimodal LLMs, and alignment with human annotator disagreement.
