The GEM Benchmark: Natural Language Generation, its Evaluation and Metrics
Paper · 2021 · Sebastian Gehrmann, Tosin Adewumi, Karmanya Aggarwal et al.
Summary
The authors start from the observation that progress in natural language generation (NLG) is hard to measure. New models are tested on different, predominantly English-language corpora and with familiar but flawed metrics such as ROUGE. Such a metric counts only word overlap with the reference, so it may give a high score to fluent but meaningless or inaccurate text. Human evaluations, in turn, are often impossible to reproduce. In response, the authors propose GEM, a "living" benchmark that will be updated regularly: tasks considered already solved will be replaced with harder ones, new metrics will be added, and discovered flaws will be fixed. The initial set comprises eleven datasets for summarization, data-to-text, dialogue systems and text simplification. They differ in communicative goal, input type and language. Special test sets have been added to reveal whether a model relies on "shortcuts". Each dataset is described in data cards adapted for NLG. Rather than a single leaderboard number, GEM relies on comprehensive automatic and human evaluation and on publicly released model outputs. The paper describes the data for the shared task at a workshop held at ACL 2021.
Key points
- There are 11 datasets: CommonGEN, Czech Restaurant, DART, E2E clean, MLSum, Schema-Guided Dialog, ToTTo, XSum, WebNLG, WikiAuto + Turk/ASSET and WikiLingua. Their size ranges from 5 thousand to roughly 500–600 thousand examples. About half have multiple reference texts, and more than half were additionally cleaned for GEM.
- Altogether 18 languages are covered, including ru, cs, ar, hi, zh and tr. Two datasets contain no English at all: MLSum (de/es) and Czech Restaurant (cs). The most multilingual is WikiLingua.
- Ten types of challenge sets are introduced, each probing specific aspects of model behavior.
- The evaluation infrastructure includes BLEU, METEOR, ROUGE, BLEURT, BERTScore, SARI and reference-free metrics. The baselines are built on mT5, mBART and DialoGPT. Data loaders are available via Hugging Face and TFDS.
- The authors released a template and guide for NLG data cards, and each submitted model will also have its own card. The materials are hosted at gem-benchmark.com.
