RAG-Critic: Leveraging Automated Critic-Guided Agentic Workflow for Retrieval Augmented Generation
Paper · 2025 · Guanting Dong, Jiajie Jin, Xiaoxi Li et al.
Summary
Retrieval-augmented generation (RAG) systems fail in many subtle ways. Typical problems include noisy retrieval, missing details and factual slips. Generic LLM judges rarely diagnose these precisely, and hand-crafted error taxonomies generalize poorly and cost a lot to build. RAG-Critic tackles this in three stages. First, the authors gathered faulty answers from 15 LLMs on 9 RAG datasets. They organized these errors into a three-level taxonomy using LLM annotation, clustering, and human summarization. Second, they used this taxonomy to train a compact error-critic model in stages, moving from coarse to fine objectives, so that it outputs a judgement, an analysis and error tags. Third, a planning agent reads the critic's feedback and composes a correction program from predefined action functions, such as query rewriting, re-retrieval, decomposition and document refinement. A Python executor then runs that program. Gains were reported on seven RAG datasets. On a new error benchmark, the 3B critic outperformed far larger models. The work shows that structured error diagnosis can drive automatic self-correction in RAG pipelines.
Key points
- The hierarchical RAG error system has 3 tiers. The top tier holds 7 categories covering both retrieval and generation, and the finest tier holds more than 4,000 error types. The authors describe it as the first system of its kind.
- The agentic workflow draws on a library of action functions covering over 15 functionalities. The planner selects and orders these functions and generates their inputs, replacing rule-based planning.
- On the RAG-Error benchmark, RAG-Critic (3B) reached roughly 96% in coarse correct/error identification. It also exceeded 50% in fine-grained tagging, whereas o1-preview, GPT-4o, Claude 3.5, Qwen2.5-72B and Llama 70B models scored below 40% on second-tier labels.
- In the ablation study, removing any component reduced performance. Dropping the error-critic model caused the steepest decline, and removing either the data-driven or the manual part of taxonomy construction also hurt.
- In an error analysis of Qwen2.5-7B and Llama3.1-8B, generation-stage errors (58.7%) were more common than retrieval-stage errors (41.3%). More than 40% of the errors stemmed from either missing information or answers that were left unfinished. Data and code are available at github.com/RUC-NLPIR/RAG-Critic.
