Template-Based Named Entity Recognition Using BART
Summary
The paper addresses few-shot named entity recognition when a low-resource target domain (such as movies or restaurants) uses entity categories different from those in a rich source domain (news). Softmax and CRF taggers need a fixed label inventory, so they must be retrained for each new domain. Distance-based few-shot methods avoid retraining, but they never update the network's weights. The authors instead recast NER as ranking sentences with a seq2seq model. BART encodes the input sentence and scores filled natural-language templates for every candidate span. One template type asserts that a span belongs to a given type, and another asserts that it is no entity at all. Each span receives the label whose template scores highest. Because labels are expressed as words, new categories need no new output layer, and the model can exploit semantic links between labels such as "person" and "character". The approach matches strong supervised systems on CoNLL03. It clearly beats fine-tuned BERT and distance-based baselines on few-shot transfer to MIT Movie, MIT Restaurant and ATIS, and it supports continual learning.
Key points
- On CoNLL03 (rich-resource setting), template-based BART reaches 92.55% F1, which is competitive with label-specific state-of-the-art models.
- In low-resource settings it exceeds fine-tuned BERT by 10.88 F1 on MIT Movie, 15.34 F1 on MIT Restaurant and 11.73 F1 on ATIS.
- Pre-training on the source domain helps the template model more than it helps BERT:
- template model: average gains of 6.6 F1 (MIT Restaurant), 6.9 F1 (MIT Movie) and 5.4 F1 (ATIS) over training from scratch;
- BERT: gains of 3.1, 1.9 and 4.3 F1 on the same datasets.
- Performance depends on how close a new label is semantically to the source labels. With 50 examples per type on MIT Movie, "ACTOR" (close to "PERSON") scores 84.81 F1, while "SONG" scores only 34.97 F1.
- In continual learning, training further on the MIT datasets degrades CoNLL03 performance only slightly. The code is public at github.com/Nealcly/templateNER.
