InstructAlign: High-and-Low Resource Language Alignment via Continual Crosslingual Instruction Tuning

Paper · 2023 · Samuel Cahyawijaya, Holy Lovenia, Tiezheng Yu et al.

Summary

Instruction-tuned LLMs such as BLOOMZ cover only a small set of languages. Adapting them to new low-resource languages with standard methods, such as continual MLM pretraining or adapters, tends to cause catastrophic forgetting, so the models lose their zero-shot multitask ability. The authors propose InstructAlign, a continual instruction-tuning framework. It teaches a model new languages (L2) by linking them to the high-resource languages it already knows (L1), using only small amounts of parallel text. Parallel sentence pairs are turned into three types of instruction prompts: TLM, a denoising task that draws on both languages; MT, which asks for translation from one language to the other; and XSS, which judges semantic similarity across languages. To preserve earlier skills, data from previously learned tasks is mixed back into training through experience replay. The authors tested the method on BLOOMZ using Indonesian local-language benchmarks. L2 performance rose by roughly 5–10% weighted F1, while L1 and multitask performance stayed largely intact. The gains also carried over to related languages never seen in training (L3). This makes the approach a practical, data-light way to extend instruction-tuned models to underrepresented languages.

Key points

  • Backbone and setup: BLOOMZ, a decoder-only model, at the 560M and 1.1B sizes. Experience replay was the only continual-learning technique tested, and it requires no change to the loss function.
  • Training objectives: The alignment-based objectives (TLM, MT, XSS) are compared against plain monolingual MLM. The alignment objectives proved more effective when parallel data is limited.
  • Evaluation data: NusaX (sentiment), NusaTranslation (sentiment), and NusaParagraph (emotion recognition and topic classification). The test sets contain 4,400, 10,400, 5,700, and 6,250 examples respectively.
  • Transfer to unseen languages: Improvements on L2 and on unseen L3 languages are strongly correlated (Pearson's r = 0.96). Transfer is weaker for distant languages such as Toba Batak (bbc) and Buginese (bug), which share little vocabulary with the others.
  • Limitations and code: Only the Malayo-Polynesian branch of Austronesian was studied, and no encoder-decoder or larger models were tested. Code is available at github.com/HLTCHKUST/InstructAlign.
