Multimodal Pretraining Unmasked: A Meta-Analysis and a Unified Framework of Vision-and-Language BERTs

Paper · 2021 · Emanuele Bugliarello, Ryan Cotterell, Naoaki Okazaki et al.

Summary

Many vision-and-language (V&L) BERTs have appeared recently. They fall into two groups: single-stream encoders, which run one Transformer over concatenated image regions and text tokens, and dual-stream encoders, which use separate per-modality stacks followed by cross-modal layers. Each model was trained with its own data, objectives and hyperparameters, so it was unclear whether reported gains came from the architecture at all.

The authors show that both groups can be expressed as special cases of one gated bimodal Transformer layer. They implement this framework as VOLTA, an open-source PyTorch library. Using it, they re-implement five models and pretrain each on Conceptual Captions under identical settings, repeating pretraining with ten random initializations. They then fine-tune on downstream tasks such as NLVR2 and RefCOCO+.

Under matched conditions, the models score far closer together than their papers suggest. Most published gaps are explained by training data and hyperparameters, and the two families perform on par. However, the embedding layer and random seeds still cause substantial differences. The study argues for controlled comparisons and variance reporting before anyone claims state-of-the-art results.

Key points

  • Released resources: the VOLTA framework (github.com/e-bug/volta) and many pretrained models. The experiment code is at github.com/e-bug/mpre-unmasked.
  • Published V&L BERTs used 3M–10M image–text pairs, with both in-domain data (e.g., VQAv2) and out-of-domain data (e.g., Conceptual Captions). In the controlled setup, every model was pretrained for 10 epochs on Conceptual Captions, 10 times each.
  • VL-BERT, VisualBERT and UNITER differ only in their embedding layer in this setup, yet their results diverge markedly. VisualBERT omits region location encodings and does considerably worse on RefCOCO+. Swapping embeddings between ViLBERT and UNITER was also tested.
  • Pairwise model differences were checked with exact tests, using a 0.005 threshold after Bonferroni correction. Single runs proved insufficient because both pretraining and fine-tuning seeds cause notable variance.
  • Pretraining one model 10 times for 4 tasks takes about 200 GPU-days, or roughly $6,000 on AWS. The full study used around 1,500 GPU-days, which raises environmental cost concerns.
