Summary
Self-attention compares every token with every other token, so its time and memory costs grow quadratically with sequence length. This makes long documents, images and video expensive to handle. Since 2020, many "X-former" variants (Reformer, Linformer, Performer, Longformer and others) have tried to fix this, and the volume of work is hard to follow. The authors, from Google Research, wrote this survey to organize that literature. It covers language and vision models and groups them in a taxonomy by technical idea and main use case. The authors also explain each model, show how the models relate, and discuss evaluation practice and general design trends. Later revisions in 2021–2022 add sparse mixture-of-experts models and alternative architectures. The authors conclude that no efficient variant has yet replaced the standard quadratic Transformer. They also caution that "efficient" does not always mean faster. The survey is a practical map for anyone choosing an architecture for long-sequence tasks.
Key points
- The QKᵀ product needs N² time and memory. The feed-forward layers, which scale linearly with length, still account for about half of a Transformer's compute.
- Roughly a dozen efficiency-focused models appeared in about six months before August 2020. The survey was revised in December 2021 and March 2022, the latter adding models such as ST-MoE-32B.
- Linear-attention models such as Performer often fall behind on standard benchmarks, while local or fixed-pattern models (Sparse Transformer, Longformer, ETC, BigBird) are used more, especially for long-context QA.
- Practical obstacles include custom CUDA kernels that are hard to run on TPUs, difficult causal masking, and little or no speed gain on short inputs.
- S4, a structured state space model, succeeded on Path-X, the most difficult of the Long Range Arena benchmark's tasks.
