Summary
Reasoning-oriented LLMs trained with RL perform well on maths and code, but they depend on what they memorised. On knowledge-heavy or time-sensitive questions this leads to errors and hallucinations. R1-Searcher addresses this by teaching a model, through reinforcement learning alone, to call an external search tool while it reasons. It uses no SFT warm-up, no distillation and no process-level rewards.
Training has two stages:
- Stage 1 rewards the model simply for issuing retrieval calls in a valid format, so it learns the tool protocol.
- Stage 2 drops that incentive and instead scores answer quality.
The algorithm is an adapted Reinforce++. Generation pauses whenever a query is emitted, retrieved documents are inserted into the context, and the loss is computed with a retrieval mask. Training questions come from HotpotQA and 2WikiMultiHopQA and are filtered by difficulty.
With Qwen-2.5-7B-Base and Llama-3.1-8B-Instruct backbones, the method beats strong RAG pipelines built on GPT-4o-mini. It also transfers to the unseen Bamboogle set when using live web search. This suggests that small open models can learn adaptive, multi-step retrieval cheaply at inference time.
Key points
- Training data: questions were drawn from the HotpotQA and 2WikiMultiHopQA training sets. They were bucketed by how many rollouts Qwen-2.5-7B-Instruct with local retrieval needed to solve them: easy (<10), medium (10–20) and difficult (>20).
- Rewards:
- Stage 1 gives 0.5 for at least one retrieval call plus 0.5 for correct format.
- Stage 2 uses a word-level F1 answer reward and a −2 penalty for bad format.
- Training algorithm: Reinforce++ modified with RAG-based rollout, using
<|begin_of_query|>and<|begin_of_documents|>tags, and a retrieval mask-based loss. - Main results: with Qwen-2.5-7B-Base, the model scores up to 48.22% higher than ReARTeR (GPT-4o-mini) on HotpotQA and 21.72% higher on 2Wiki. It is also 11.4% better than the 32B Search-o1 on Bamboogle with online search.
- Evaluation setup: four multi-hop benchmarks (HotpotQA, 2WikiMultiHopQA, Bamboogle, Musique), scored by LLM-as-Judge. Code is released at github.com/RUCAIBox/R1-Searcher.
