When Being Unseen from mBERT is just the Beginning: Handling New Languages With Multilingual Language Models

Summary
The paper asks how multilingual pretrained models such as mBERT can serve "unseen" languages, meaning languages absent from their pretraining data and often limited to small raw corpora. The authors study 15 typologically diverse low-resource languages and three tasks: POS tagging and dependency parsing on UD treebanks, and NER on WikiAnn. For each language they compare four approaches: plain mBERT, mBERT further trained with its masked-LM objective on target-language text (MLM-TUNING), a small RoBERTa-style model trained from scratch, and strong non-contextual baselines. Raw text comes mostly from OSCAR, with Wikipedia dumps and other corpora used where OSCAR is lacking. The results fall into three groups, which the authors call Easy, Intermediate and Hard languages. For the Hard group, the main barrier turns out to be the writing system. Converting these languages into a script used by a related language seen in pretraining, usually Latin, yields large gains. This matters because it offers an inexpensive way to extend existing models to underserved communities without training ever larger multilingual models.
Key points
- Experimental setup:
- 15 unseen languages, including Faroese, Naija, Swiss German, Mingrelian, Sorani Kurdish, Uyghur, Meadow Mari, Buryat, Erzya, Livvi and Narabizi.
- Baselines are UDPipe future for POS/parsing and an LSTM-CRF for NER.
- The from-scratch model uses a SentencePiece tokenizer and a 6-layer RoBERTa (base) architecture.
- mBERT's vocabulary is heavily skewed toward Latin script: over 77% of subwords are Latin, while only about 1% are Georgian. XLM-R behaved much like mBERT, so only mBERT results are reported.
- Transliteration helped Hard languages such as Sorani, Uyghur and Meadow Mari, matching or beating the non-contextual baselines. In Uyghur, it added 12.5 points of POS accuracy.
- As a control, transliterating high-resource languages already seen in pretraining (Arabic, Russian, Japanese) into Latin script lowered performance. For Arabic, the drops were 1.5 (POS), 4.1 (LAS) and 6.9 (NER) points.
- Conclusion on cross-script transfer: it appears to work only when the model saw related languages in that script during pretraining. Code is available at github.com/benjamin-mlr/mbert-unseen-languages.
