Bridging the Gap between Synthetic and Authentic Images for Multimodal Machine Translation
Summary
Multimodal machine translation (MMT) systems usually need an image paired with each source sentence, but such images are rarely available at test time. One workaround is to generate a picture from the source text with a text-to-image model. However, these generated images differ statistically from real photos. A model trained on real images and tested on generated ones therefore faces a distribution mismatch that hurts translation quality.
The authors build on the Multimodal Transformer and use Stable Diffusion to create a synthetic image for every training sentence. The model is trained on both the synthetic and the authentic image for each sentence. Two consistency objectives keep the model's behaviour aligned across the two image types:
- an Optimal Transport loss pulls the visual input representations together on the encoder side;
- a KL divergence loss aligns the predicted target distributions on the decoder side.
At inference, only the synthetic image is needed. The approach reports state-of-the-art results on Multi30K En-De and En-Fr without any real images at test time. This makes MMT usable in realistic, image-free settings.
Key points
- Images are generated with pre-trained Stable Diffusion, encoded with the CLIP image encoder, and projected to word-embedding size through an FFN. The translation loss averages the losses obtained with synthetic and with authentic images.
- The encoder-side alignment uses a relaxed OT distance with L2 cost, following Kusner et al. (2015), which speeds up training. The authors argue this works better than plain cosine or L2 matching. The decoder side uses a KL divergence term.
- On 1,000 sentences of En-De Test2016, sentence-level BLEU went up for 34% of instances compared with a TEXT-ONLY baseline and down for 24.9%. A professional German annotator judged that 35.7% of instances benefited from visual features and 30.8% did not.
- Limitations: image generation adds computational cost, and the method only covers English-to-X translation because the text-to-image model supports English only.
- Code is released at github.com/ictnlp/SAMMT.
