Controllable Paraphrase Generation with a Syntactic Exemplar

Summary
Most controllable text generation assumes the controlled attribute, such as sentiment or formality, has a small set of values fixed in advance. This paper proposes a more open setting. The system receives a semantic input sentence X and an arbitrary syntactic exemplar sentence Y, and it must produce a sentence Z that keeps the meaning of X while following the structure of Y.
To make the task measurable, the authors built a human-annotated evaluation set of (X, Y, Z) triples. Exemplars were first retrieved automatically and then heavily rewritten by annotators.
The authors also introduce VGVAE, a variational autoencoder with two latent variables:
- a vMF-distributed latent for semantics,
- a Gaussian latent for syntax.
Training combines paraphrase-based and word-order multi-task losses with word noising and latent word-cluster codes on the syntactic side. The model needs no parser or tagger at test time, beats its baselines, and learns interpretable, disentangled representations. The SCPN baseline is strong but depends on the quality of its test-time parses. Controlling generation by example removes the need to list attribute values beforehand.
Key points
-
Evaluation dataset. Each triple was edited so that Z differs in meaning from Y, matches Y syntactically, and differs syntactically from X. Systems are scored with BLEU, ROUGE and METEOR, plus a new syntactic metric. This metric is the tree edit distance between word-stripped constituency parses of Y and Z.
-
VGVAE architecture.
- The semantic encoder is word averaging plus a 3-layer feed-forward network, with a uniform vMF(·, 0) prior. vMF samples are drawn by acceptance-rejection, following Davidson et al. (2018).
- The syntactic encoder is a biLSTM with an N(0, I) prior.
-
Training tricks. A POS tagger is used only during training, to noise words in the syntactic input. The word position loss gives consistent, sizeable gains on syntax-related metrics. The latent codes produce interpretable word clusters.
-
Decoder ablation (Table 9).
Variant BLEU ROUGE-1 ROUGE-L METEOR Tree edit distance (ST) Default VGVAE 4.5 26.5 31.5 13.3 10.0 INIT 3.5 22.7 24.9 9.8 11.5 SWAP 4.3 25.6 30.4 12.5 10.5 Feeding the latents at every time step helps.
-
Shared failure modes with SCPN. Outputs copy the exemplar's length, pronouns become inconsistent, and the model sometimes copies exemplar words or produces nonsense. Code and data are at github.com/mingdachen/syntactic-template-generation.
