Improving Cross-lingual Transfer through Subtree-aware Word Reordering
Summary
Multilingual models such as XLM-R and mT5 still transfer knowledge poorly to typologically distant languages, especially when data are scarce. One reason is differences in word order. Earlier word-reordering methods relied on hand-written rules for particular languages or on POS-tag statistics, or they changed only the main clause. The authors propose a method formulated in terms of Universal Dependencies. Using a small amount of annotated data in the target language, they estimate how likely a node with one label is to precede a node with another label when both depend on a head with a given label. These pairwise ordering constraints (POC) are passed to an SMT solver. The solver recursively orders subtrees at every level of the syntactic tree without breaking up constituents. The English training data are reordered to match the word order of the target language. The method was tested on UD parsing, semantic parsing (MTOP) and relation classification in zero-shot and few-shot settings. It consistently outperforms strong baselines across language pairs and architectures. For low-resource languages, the approach is valuable because it is easy to interpret and needs only a small treebank or a parallel corpus.
Key points
- For each triple of labels "parent node — child A — child B", a Pairwise Ordering Distribution is computed. The constraint requires A to be placed before B if this probability exceeds 0.5. A copy of the head is treated as one of its own children, so that the head can be distinguished from the subtree it represents.
- For stable gains, the reordered data must be combined with the original data (ENSEMBLE mode). For closely related languages, reordering does not help on some tasks.
- Two architectures based on XLM-RoBERTa-large were compared: an encoder with a biaffine classifier (E+C) and seq2seq (S2S). In zero-shot, S2S achieves less than half of the E+C result, but it gains more than twice as much from reordering on distant languages. Example for Hindi (LAS normalized by English): S2S rose from 20.6 to 48.7, E+C from 54.0 to 58.4.
- The gains persist in the few-shot setting on MTOP with mT5, when the model is trained on only a few hundred examples.
- The code is available at github.com/OfirArviv/ud-based-word-reordering. If no UD treebank exists for a language, the POC can be estimated through annotation projection on a massively parallel corpus.
