Learning bilingual word embeddings with (almost) no bilingual data

Summary
Bilingual word embeddings usually need parallel corpora or a seed dictionary of several thousand translation pairs, which many language pairs, especially low-resource ones, lack. Artetxe, Labaka and Agirre show that this supervision can shrink to almost nothing. Their method trains monolingual embeddings separately, learns a linear mapping between the two spaces from a tiny seed dictionary, and then induces a new full dictionary by nearest-neighbour search. It then retrains the mapping on that induced dictionary, repeating until convergence. The mapping step follows Artetxe et al. (2016). Vectorized, chunked similarity computation keeps each iteration fast. The loop works with any dictionary-based mapping method. It also succeeds when the seed is only 25 word pairs or an automatically built list of numerals (1-1, 2-2, …), so no real bilingual data is needed. Whether the task is inducing a bilingual lexicon or scoring how similar words are across two languages, the results are competitive with systems that use much richer resources. Analysis suggests the procedure implicitly optimizes a dictionary-independent objective based on the structural similarity of embedding spaces. This points toward fully unsupervised cross-lingual embeddings.
Key points
- The self-learning loop alternates two steps: learn the mapping W from dictionary D, then re-induce D by nearest-neighbour search (dot product after length normalization and mean centering).
- With five different 25-entry seed dictionaries for English-Italian lexicon induction, average accuracy was 38.15% with a standard deviation of only 0.75%. This shows low sensitivity to the choice of seed.
- Predictions starting from the numerals dictionary overlap 76.00% with those starting from the full 5,000-entry dictionary (60.00% for the 25-entry seed). Random initialization, however, gets stuck in a poor local optimum and yields 0% accuracy.
- Manual error analysis of English-Italian output found that about a third of the "errors" were actually valid translations or morphological variants. Nearly a third of the true errors involved named entities (e.g., Volvo → BMW).
- Evaluation covers bilingual lexicon induction and crosslingual word similarity. Baselines include Artetxe et al. (2016) and Zhang et al. (2016); the latter, which uses 10 word pairs, fails on fine-grained lexicon induction.
