ConvSearch-R1: Enhancing Query Reformulation for Conversational Search with Reasoning via Reinforcement Learning

Paper · 2025 · Changtai Zhu, Siyin Wang, Ruijun Feng et al.

Summary

In conversational search, user queries often depend on earlier turns. They may leave things out, be vague, or refer back to prior context. Conversational Query Reformulation (CQR) rewrites such queries into stand-alone versions that a standard retriever can handle. Earlier CQR systems learned from rewrites written by humans or produced by large LLMs, which is expensive. Their outputs were also not tuned to what the downstream retriever actually rewards.

ConvSearch-R1 needs no external reference rewrites at all. Its training has two stages:

  1. Self-Driven Policy Warm-Up: a 3B model is prompted with few-shot examples to produce candidate rewrites. Only the rewrites that rank the gold passage first are kept and used for fine-tuning.
  2. Reinforcement learning: GRPO is applied with a rank-incentive reward. This reward gives denser, smoother feedback than sparse metrics such as Recall@K. The model also reasons before writing each rewrite.

On TopiOCQA and QReCC, the method beats earlier state-of-the-art systems, including ones built on 7B models. This shows that retrieval feedback alone can train a strong rewriter cheaply.

Key points

  • Backbones are Qwen2.5-3B and Llama3.2-3B. Retrievers are BM25 (sparse) and ANCE (dense).
  • With dense retrieval on TopiOCQA, average gains over the previous best are 10.3% (Llama3.2-3B) and 10.7% (Qwen2.5-3B).
  • Ablations confirm the value of both components. Models trained without the warm-up stage, and models rewarded with raw MRR@3, NDCG@3, R@10 or R@100, all perform worse.
  • In scaling tests with Qwen2.5 models, even the 0.5B model beats the baseline with ANCE, and the gap widens as models get larger.
  • Code, data and models are released at github.com/BeastyZ/ConvSearch-R1. Stated limitations are that no model above 7B was trained and that reasoning makes outputs longer, which raises inference cost.
