LongEmbed: Extending Embedding Models for Long Context Retrieval

Paper · 2024 · Dawei Zhu, Liang Wang, Nan Yang et al.

Summary

Most text embedding models handle only about 512 tokens, which limits retrieval over long sources such as books, meeting transcripts or long Wikipedia pages. Training long-context encoders from scratch is costly; BGE-M3, for example, needed 96 A100 GPUs for 8k context. The authors instead ask whether existing embedding models can be stretched to longer inputs, up to 32,768 tokens. They first build the LongEmbed benchmark, because BEIR documents are too short and LoCo places key information near document starts. LongEmbed has two synthetic tasks with controllable length and four real tasks whose relevant content is spread through long documents. They then test plug-and-play extension techniques: parallel context windows, position-id reorganization and position interpolation. For APE models, they also tune only the newly added position embeddings. These training-free methods extend usable context several times over. RoPE-based models benefit most, especially with NTK and SelfExtend. The work matters because it offers a cheap route to long-document retrieval and RAG, and it gives evidence for choosing RoPE in future embedding models.

Key points

  • LongEmbed tasks: NarrativeQA, QMSum, 2WikiMultihopQA and SummScreenFD as real tasks, plus personalized passkey and needle retrieval as synthetic ones. The synthetic tasks span 256 to 32k tokens, with 50 queries per length and 100 candidate documents each.
  • Benchmark gap: with only 512 tokens of context, E5 Base already reaches over 85% nDCG on 3 of the 8 public LoCo tasks. This shows that LoCo's target information is concentrated in a biased way.
  • E5-Mistral with NTK: this combination reaches 32k context, with near-perfect passkey accuracy and the best LongEmbed results.
  • APE models: E5 Base was extended from 512 to 4k tokens by freezing the original weights and training only the new position embeddings. Tuning on top of PI beat tuning on top of RP, and GTE Base gained about 5 points from tuning.
  • APE vs. RoPE: E5-RoPE Base was pre-trained like E5 for a controlled comparison. Without any extra training, it outperformed even the tuned E5 Base, and its advantage grew with longer contexts.
  • Released resources: the benchmark, code, E5 Base-4k and E5-RoPE Base are public. LongEmbed is also integrated into MTEB.
