DP³: Differentially Private Prompt Perturbation for Multi-turn LLM Inference
Paper · 2026 · Lele Zheng, Chao Zhang, Feiyang Yuan et al.
Summary
Prompts sent to black-box LLM APIs can expose sensitive data. A common defence is client-side perturbation under local differential privacy (ε-LDP). Existing token-substitution schemes such as SANTEXT, CUSTEXT, InferDPT and CAPE handle each query in isolation, and this fails in conversations. Tokens that reappear across turns get re-randomized every time, so sequential composition makes the privacy cost grow. Independent substitutions also weaken the semantic links between turns.
DP$^3$ is an ε-LDP framework built for multi-turn inference. It has three parts:
- A perturbation mapping table (PMT) lets a repeated token reuse its earlier replacement.
- A utility function ranks candidate substitutes by combining embedding distance with attention-derived context from a small local model.
- A two-stage bucketed exponential mechanism samples replacements while limiting the long tail of a large candidate set.
On multi-turn dialogue benchmarks, including MT-Bench-101, the authors report a better privacy–utility balance and stronger resistance to inference attacks than the baselines. This matters for using chat assistants on confidential inputs when model internals are inaccessible.
Key points
- PMT ablation (MT-Bench-101, ε = 1, K = 5):
- DP$^3$ accuracy rises from 1.99% to 18.33% with PMT.
- Adding PMT to baselines helps little: SANTEXT goes from 15.83% to 18.10%, CUSTEXT from 3.62% to 4.07%, and InferDPT does not change.
- Bucket size: K was varied over {5, 10, 20, 100, 200}. Smaller buckets gave clearly higher utility.
- Client-side cost:
- DP$^3$ runs a local BERT-base model (~110M parameters).
- It uses about 31.44 GB of RAM and 5767.1 MiB of VRAM.
- Perturbation takes 58.21% of end-to-end time, compared with 12.38% for CAPE and 82.71–95.54% for SANTEXT, CUSTEXT and InferDPT.
- Limitations:
- PMT depends on identical token forms, so paraphrasing or language switching reduces its benefit.
- A poor first substitution propagates to later turns.
- Deterministic mappings may leak frequency patterns over long histories.
