Insights into DeepSeek-V3: Scaling Challenges and Reflections on Hardware for AI Architectures

Paper · 2025 · Chenggang Zhao, Chengqi Deng, Chong Ruan et al.

Summary

Hardware, more than algorithms, now limits how large language models scale. Memory capacity, compute efficiency and interconnect bandwidth all trail model growth, and only a few companies can afford giant clusters. This Industry Track paper from DeepSeek-AI at ISCA '25 does not repeat the DeepSeek-V3 technical report. Instead, it explains how the model and its infrastructure were built around the limits of a 2,048-GPU NVIDIA H800 cluster.

The authors cover several techniques:

  • Multi-head Latent Attention (MLA), which compresses the KV cache.
  • DeepSeekMoE, which balances computation against communication.
  • FP8 mixed-precision training.
  • A Multi-Token Prediction Module, which speeds up decoding through speculative decoding.
  • A Multi-Plane two-layer Fat-Tree network, which lowers networking cost.

From the bottlenecks they hit, they draw recommendations for future accelerators and networks. The paper offers a concrete co-design playbook showing that state-of-the-art models can be built without massive clusters. It also tells chip and network vendors what LLM workloads will need next.

Key points

  • DeepSeek-V3 was trained on only 2,048 NVIDIA H800 GPUs. The paper treats this as an example of hardware-aware design that cuts training and inference costs.
  • The authors cite a growing memory gap: LLM memory needs rise more than tenfold per year, while HBM capacity grows by under 50% annually. MLA and FP8 address this, with FP8 halving weight memory compared with BF16.
  • Replacing a three-layer Fat-Tree with a Multi-Plane two-layer Fat-Tree reduced cluster networking cost. The LogFMT format allows low-precision token transmission in expert-parallel communication.
  • Proposed network directions include:
    • adaptive routing such as packet spraying;
    • fault-tolerant link protocols;
    • hardware ordering guarantees for memory-semantic communication, using PSN-based buffering or a region-based acquire/release (RAR) scheme;
    • in-network multicast and aggregation for MoE dispatch/combine.
  • Proposed memory directions include DRAM-stacked accelerators (e.g., SeDRAM) and System-on-Wafer integration to ease memory-bandwidth limits.
