Follow the Path: Reasoning over Knowledge Graph Paths to Improve Large Language Model Factuality
Paper · 2026 · Mike Zhang, Johannes Bjerva and Russa Biswas
Summary
The paper asks whether "thinking"-style reasoning, which has mostly helped LLMs on math and STEM tasks, also improves factual accuracy on complex multi-hop open-domain QA. The authors first collect reasoning traces from QwQ-32B and Deepseek-R1 on the CWQ development set, keeping only traces with correct final answers (rt, 3.4K samples).
They then build fs1. Freebase entities are mapped to Wikidata, and a minimum-hop SPARQL search finds paths from question entities to gold answers. These paths are linearized as subject–relation–object triples and supplied to the same models as hints, which yields 3.9K KG-grounded traces.
Eight instruction-tuned models (360M–32B parameters) are fine-tuned on these traces with standard supervised fine-tuning. They are evaluated on six benchmarks totalling 23.9K questions. With parallel sampling, the fs1-tuned Qwen2.5-32B outperforms its instruction-tuned counterpart by 6–14 absolute points at pass@16. The largest gains appear on questions needing three or more hops and on numerical answers.
The study shows that anchoring reasoning in KG facts is a practical way to make LLMs more dependable for knowledge-heavy tasks.
Key points
- Training data: The datasets are rt (3,434 traces) and fs1 (3,886 traces). fs1 traces are more often correct under all three checks: exact match, MiniLM semantic match, and a gpt-4o-mini judge. For Deepseek-R1, fs1 traces are also shorter (median 496 vs 635 subwords).
- Benchmarks: CWQ, ExaQT, GrailQA, SimpleQA, Mintaka (English split only) and WebQSP.
- Baselines: Qwen2.5-72B-Instruct, QwQ-32B, Deepseek-R1 and o3-mini.
- Training setup: The recipe follows s1 (Muennighoff et al., 2025): 5 epochs, sequence length 8,192, batch size 16, learning rate 1e-5 with a cosine schedule.
- Model size: In single-pass (pass@1) inference, the smallest models (below roughly 1.7B parameters) gain the most, while larger models improve less.
- Limitations: pass@k is an upper bound, so real use would need a selection step such as majority voting or a verifier. The test sets are English-only and partly older, so they may overlap with the models' training data.
- Release: Code, models and traces are available under MIT at github.com/jjzha/fs1.
