DPEPO: Diverse Parallel Exploration Policy Optimization for LLM-based Agents

Paper · 2026 · JunShuo Zhang, Chengrui Huang, Feng Guo et al.

Summary

Most LLM agents follow the ReAct loop: they take one action, observe one result, and proceed step by step. The authors argue that this single-environment view limits exploration and gives the agent a partial picture of its surroundings. Simply sampling several independent runs does not solve this, because the runs tend to repeat the same choices and do not share what they learn. The paper therefore proposes a paradigm in which one agent acts in several copies of an environment at once and pools what it observes across them. On top of this, the authors build DPEPO, a two-stage training recipe. A supervised cold start teaches the agent the parallel output format. Reinforcement learning then uses a hierarchical reward that combines task success with penalties for redundant actions and repeated state transitions. On ALFWorld and ScienceWorld, DPEPO reports state-of-the-art success rates. It also needs fewer steps and less wall-clock time than sequential baselines. This suggests that broader, deliberately diverse exploration can improve agents without making them slower.

Key points

  • Cold-start data: Five trajectories were annotated by hand, and DeepSeek-V3.2 expanded them into a larger synthetic SFT set containing parallel actions.
  • Reward design:
    • A parallel trajectory-level success reward counts a run as successful if any environment reaches the goal.
    • A Diverse Action Reward penalises repeated actions, both within one environment and across environments at the same step.
    • A Diverse State Transition Reward penalises repeated state transitions.
    • All rewards are combined through group-relative advantages.
  • Inference cost on ALFWorld: Compared with GiGPO, DPEPO uses more tokens (2283.4 vs 1115.1) but needs fewer steps (12.3 vs 15.2) and less time (44.7 s vs 70.8 s).
  • Training cost with Qwen2.5-1.5B-Instruct: DPEPO reaches its best performance in about 24 hours, cold start included, using 500 RL samples. GiGPO needs roughly 96 hours to peak.
  • Limitation: The method assumes parallel copies of an environment can be created, which is hard in many real-world settings. Code is released at github.com/LePanda026/Code-for-DPEPO.
