MAP-Neo: Highly Capable and Transparent Bilingual Large Language Model Series

Paper · 2024 · Ge Zhang, Scott Qu, Jiaheng Liu et al.

Summary

The strongest LLMs are either closed or release only weights. They keep training data, code and intermediate checkpoints private. Fully transparent alternatives such as Pythia, Amber and OLMo share these components but trail open-weight models of similar size, especially on math, coding, knowledge and non-English tasks. MAP-Neo aims to close this gap. It is a 7B-parameter English–Chinese model trained from scratch on about 4.5T tokens, and the authors publish every stage of its development: the cleaned pre-training corpus (Matrix Data Pile), the data processing pipeline, the tokenizer, base and aligned models, intermediate checkpoints, and training and evaluation code.

The data work combines several sources. Open datasets were re-filtered and deduplicated, new web text was crawled, and documents were converted with an OCR-based pipeline. Training ran in two pre-training phases and was followed by supervised fine-tuning and iterative DPO.

Among transparent models, MAP-Neo scores highest on every benchmark the authors report. It also approaches open-weight models such as Mistral-7B and LLaMA3-8B. The project serves as a reproducible recipe for building LLMs, which is particularly useful for communities working in languages other than English.

Key points

  • Model and corpus: MAP-Neo-7B was trained on 4.5T tokens from the released Matrix Data Pile corpus. Supporting tools include Spark-based distributed processing, an OCR pipeline, a DeepSeek-Math-style data recall step, and robustness fixes to Megatron-LM.

  • Tokenizer: a BPE tokenizer built with SentencePiece, with these settings:

    • vocabulary of 64,000 entries and maximum piece length of 16, to help Chinese;
    • numbers split into single digits, with byte fallback for unknown UTF-8 characters;
    • code, math and academic text upweighted in the tokenizer training data.
  • Benchmark results (Table 1): C-EVAL / MMLU / GSM8K / HumanEval scores.

    ModelC-EVALMMLUGSM8KHumanEval
    MAP-Neo-7B57.6858.1453.6823.8
    OLMo-7B35.2153.5228.4311.6
    LLaMA3-8B49.8366.5254.7433.5

    MAP-Neo-7B leads all transparent models, but it still falls behind LLaMA3-8B on MMLU and HumanEval.

  • Transparency: MAP-Neo-7B is the only model in the comparison that releases all four components: intermediate checkpoints, pre-training corpus, reproduction code and data cleaning process.

  • Other contributions: the paper proposes a "NEO Scaling Law" for pre-training on mixed-source data. Alignment combines SFT with iterative DPO.
