DARG: Dynamic Evaluation of Large Language Models via Adaptive Reasoning Graph
Paper · 2024 · Zhehao Zhang, Jiaao Chen and Diyi Yang
Summary
Static LLM benchmarks have two weaknesses. Their test items may have leaked into training corpora, and their difficulty stays fixed while models keep improving. Template generators such as DyVal produce rigid, unnatural problems. Prompt-based rewriting (DyVal 2, Benchmark Self-Evolving) offers little control and cannot guarantee correct labels. DARG turns each benchmark item into a reasoning graph: a directed acyclic graph whose nodes are basic reasoning units and whose edges are operations. An LLM builds the graph, which is kept only if a rule-based solver run on it reproduces the gold answer. The graph is then perturbed along one chosen complexity dimension, such as depth, width, number size, attributes or brackets. It is rewritten as text in the original style and checked by a code-augmented LLM agent. Across 15 recent LLMs and four reasoning domains, accuracy drops almost everywhere as complexity rises, and bias grows in social and spatial tasks. The framework offers a reusable way to refresh benchmarks with controlled difficulty and verified labels.
Key points
- Four domains, each with one source dataset: math (GSM8K), social (BBQ), spatial (BBH Navigate) and symbolic (BBH Dyck Language).
- Graph extraction uses GPT-4 Turbo with in-context exemplars. Failed graphs are resampled at high temperature until the computed label matches the original.
- Larger models and mixture-of-experts models with more active parameters were generally more robust to added complexity. GPT-4 Turbo and Mixtral 8×22b were the most resilient on Dyck inputs, but all models declined at 16–32 input nodes.
- On social reasoning, strong models such as GPT-4 Turbo and Gemini-1.5-Pro became overly sensitive to content about protected groups as complexity increased.
- Mistral-7B and Llama2-7B fine-tuned on DARG-generated GSM8K data beat versions trained on the same amount of original GSM8K training data. Code is at github.com/SALT-NLP/DARG.
