Deliberative Searcher: Improving LLM Reliability via Reinforcement Learning with Constraints
Paper · 2026 · Zhenyun Yin, Shujie Wang, Xuhong Wang et al.
Summary
Search-augmented LLMs often give wrong answers while sounding fully sure of themselves. The authors address this with Deliberative Searcher, an agent that puts reasoning first and treats web retrieval as a supporting tool. While generating its chain of thought, the model can think, issue a search query, and read a full document after skimming result abstracts. It also states a confidence level from 0 to 10, revises it after each observation, and ends with an answer plus a final confidence score. Training uses GRPO extended into a constrained RL problem. Answer correctness is maximized, while an adaptive Lagrange multiplier enforces a reliability constraint that rewards high confidence only for correct answers. Across five benchmarks, the 7B model rarely ends up both wrong and confident, and accuracy is kept or improved. The calibrated scores also make test-time compute cheaper, since votes can be weighted by confidence. This suggests that trustworthy uncertainty signals improve both safety and efficiency for search agents.
Key points
- The average false-certain rate drops from 54% for baselines to 2% for the 7B model, a 96% reduction. The 72B variant reaches 9% and has accuracy comparable to closed-source models.
- The base models are from the Qwen2.5-VL series, but evaluation covers only text tasks because multimodal multi-hop search benchmarks are not available.
- The action space is think / search / read / confidence / answer.
- The reward combines three components:
- format compliance;
- correctness, judged by a frozen LLM verifier;
- a reliability term requiring confidence above a threshold ζ exactly when the answer is correct.
- The dual variable starts at λ₀ = 0.01 and is updated multiplicatively. Strong duality is assumed, following Paternain et al. (2023).
- With confidence-weighted voting, 4 samples match the accuracy of 16-sample majority voting, a 4× compute saving. Intermediate step-wise confidences are not yet part of the training objective.
