CoreGaze: Core Subgraph-Driven Visual Gaze Diffusion for Training-Free Referring Multimodal Large Language Models

Paper · 2026 · Xiaoyang Yi, Jing Chen, Yuru Bao et al.

Summary

Referring multimodal LLMs let users point at an image region with a box, mask, scribble or point and ask about it. Most current systems need costly fine-tuning on large localization-annotated datasets so they focus on the indicated area. Without that training, unrelated parts of the image pull the model's attention away, which leads to verbose or hallucinated answers. CoreGaze addresses this with a training-free method that works on frozen MLLMs. It treats visual tokens as nodes of a sparse graph, linking them by thresholded cosine similarity. The tokens under the user's prompt form a "core subgraph" that starts with boosted weight. A degree-normalized random walk with restarts then spreads relevance from this core to semantically related neighbours. Tokens that receive little relevance are pruned. The remaining compact subgraph, holding both the target and its useful context, goes to the frozen LLM decoder together with the text prompt. Across several MLLM backbones, this gives large gains on referring tasks with only modest inference overhead. The result shows that precise region-level dialogue is possible without retraining.

Key points

  • The pipeline has four stages: visual encoding, sparse semantic graph construction, core subgraph mapping of the visual prompt, and gaze diffusion via restart-equipped random walks. Degree normalization is used to remove connectivity bias.
  • The method supports free-form prompts of arbitrary shape and requires no fine-tuning; the LLM decoder stays frozen.
  • On ROC (box), CoreGaze raises LLaVA-1.5-7B from 54.13 to 71.22 and LLaVA-1.5-13B from 55.69 to 72.97. It lifts InternVL3-14B from 62.86 to 78.57 and InstructBLIP-7B from 49.81 to 68.75.
  • Consistent gains also appear for InternVL2-8B, InternVL3-8B and LLaVA-HR-7B-SFT-1024. Inference latency rises moderately and memory use only slightly.
  • Attention visualizations on LVIS images show diffusion widening focus from the core region to linked context. Stated limitations include dependence on encoder token quality, sensitivity to ambiguous prompts, and weaker results for very large or heterogeneous regions.
