When to Trust Tools? Adaptive Tool Trust Calibration For Tool-Integrated Math Reasoning
Paper · 2026 · Ruotao Xu, Yixin Ji, Yu Luo et al.
Summary
Tool-Integrated Reasoning (TIR) models solve math problems by interleaving reasoning with code execution. The authors show that these models often handle disagreements between their own reasoning and the tool's output poorly. They audited more than 32k trajectories with an LLM and found that most conflicts are resolved in favour of the model's own reasoning, even when the executed code returned the right answer. They call this failure mode "Tool Ignored." To address it, they propose Adaptive Tool Trust Calibration (ATTC), a framework applied only at inference time. ATTC detects when a tool is called and assigns a confidence score to the generated code block. If the score exceeds an empirically chosen threshold, the model is prompted to accept the execution result. Otherwise, it is prompted to reconsider. The approach rests on the observation that code produced from incomplete or flawed reasoning tends to receive lower confidence. Across several open-source TIR models and math benchmarks, ATTC reduces Tool Ignored errors and improves accuracy by 4.1–7.5%. This matters because it shows that tools help only if the model knows when to rely on them.
Key points
- Reasoning–tool contradictions occur in roughly 40–60% of incorrect cases. In more than half of these conflicts, the model sides with its own reasoning.
- Across all tested model–dataset pairings, no fewer than 15% of errors stem from the Tool Ignored failure.
- The analysis covers ToRL-7B, SimpleTIR-7B, VerlTool-7B and Effective-CIR-7B on gsm8k, math500, olympiadbench and minerva_math.
- ATTC requires no retraining and works through code-block confidence scores combined with a trust or rethink signal. It improves accuracy by 4.1–7.5%, and the code is released at github.com/00Dreamer00/ATTC.
- The authors note several limitations:
- Experiments only use models smaller than 32B.
- Only code executors are tested; search engines are not.
- Some Tool Ignored cases remain, which the authors attribute to hallucination.
