ThinkNote: Enhancing Knowledge Integration and Utilization of Large Language Models via Constructivist Cognition Modeling
Paper · 2026 · Zhipeng Xu, Zhenghao Liu, Yukun Yan et al.
Summary
LLMs often struggle to use retrieved external knowledge reliably. Noisy, incomplete or unfamiliar evidence can produce inconsistent answers and hallucinations. ThinkNote addresses this by treating the model as an active builder of knowledge rather than a passive reader of context, drawing on constructivist learning theory. The framework is prompt-based and works in two stages. In knowledge assimilation, the model relates retrieved documents to what it already knows and explains how each fact helps with the question. In thought accommodation, the model first writes its own chain-of-thought from parametric memory and then revises that reasoning using the assimilated knowledge. Four instruction variants steer the learning behaviour.
On knowledge-intensive QA benchmarks, ThinkNote gains roughly 10% over strong baselines across backbones of different sizes. It stays robust when evidence is noisy, missing or conflicts with internal knowledge, and it makes answers more self-consistent. This suggests that cognitively motivated restructuring of evidence is a cheap, training-free way to improve RAG.
Key points
- Pipeline and instructions. Each answer takes three LLM calls: assimilation, an initial CoT, and accommodation. The four instruction types are:
- linking new content to knowledge the model already holds,
- grounding information the model does not recognise,
- drawing out the reasoning chain behind the evidence,
- spotting counterfactual claims.
- Evaluation setup. Tests cover PopQA, NQ, TriviaQA and 2WikiMultiHopQA with Llama-3-Instruct 8B and 70B. Baselines are Direct QA, Vanilla RAG and Chain-of-Note.
- Missing evidence. When retrieved documents lack the answer (Miss-Answer), ThinkNote roughly doubles Chain-of-Note's accuracy. For example, on NQ with the 8B model it reaches 25.8, against 8.2 for Chain-of-Note and 6.3 for Vanilla RAG.
- Self-consistency. Over 100 samples on 2WikiMultiHopQA, ThinkNote's median accuracy is about 47%, compared with 31% for Direct QA and 10% for Vanilla RAG. It also keeps improving as more top-K documents are added, while Vanilla RAG stalls.
- Limitations and availability. The extra calls and long accommodation inputs increase latency and cost. Code and data are released at github.com/OpenMatch/ThinkNote.
