Efficient Table Retrieval and Understanding with Multimodal Large Language Models
Paper · 2026 · Zhuoyan Xu, Haoyang Fang, Boran Han et al.
Summary
Most work on multimodal table understanding assumes the model already has the right table. This paper addresses a more realistic setting: a user asks a question, and the answer is somewhere in a large collection of tables stored as images, such as scans or screenshots. The authors propose TabRAG, a three-stage pipeline that avoids OCR entirely. First, a bi-encoder pairs a vision encoder for table images with a text encoder for queries. Both are fine-tuned jointly with a contrastive objective, and the system fetches candidates through FAISS similarity search. Next, a multimodal LLM rescores the shortlist by estimating how likely it is that each image is relevant to the query. Finally, the same MLLM reads the top-ranked tables and produces the answer. Reranking and generation are trained together in a single stage. For evaluation, the authors built a new dataset from eight existing table benchmarks. TabRAG beats prior approaches on both retrieval and answer quality, with modest hardware needs. This makes question answering over image-based table archives more practical.
Key points
- The new dataset contains 88,161 training and 9,819 test samples drawn from 8 benchmarks, with 48,504 distinct table images.
- TabRAG improves retrieval recall by 7.0% and answer accuracy by 6.1% over existing methods.
- The fine-tuned generator, Re-Table-Mistral-7B, was compared against Table-LLaVA. Retrieval raised FeTaQA BLEU from 1.84 (random table) to 14.36. Reranking lifted WTQ accuracy from 17.19% to 19.19%. On ToTTo, BLEU reached 52.28, above the 47.7 scored with the gold table.
- Cost was measured on one A100-40GB GPU with k = 10 and a GTE-large query encoder:
- end-to-end latency is about 1.4 s;
- peak memory is 7.8 GB;
- reranking accounts for most of the added overhead.
- The method has not yet been thoroughly validated on real-world scanned or web-scraped tables with distortions.
