GUI-explorer: Autonomous Exploration and Mining of Transition-aware Knowledge for GUI Agent
Paper · 2025 · Bin Xie, Rui Shao, Gongwei Chen et al.
Summary
Multimodal LLM agents that operate mobile apps often misread interface elements, such as a music-recognition icon in QQ Music, and their built-in knowledge becomes outdated as apps update. Fine-tuning for each app version is too costly. GUI-explorer is a training-free agent that addresses both problems in three steps:
- Exploration. A Function-aware Task Goal Generator proposes exploration goals grounded in the app's real structure: screenshots and activities declared in the APK manifest. These goals drive a depth-first exploration with state restoration, which collects diverse trajectories without human input.
- Knowledge mining. A Transition-aware Knowledge Extractor analyses (observation, action, outcome) triples without supervision. It distils atomic rules linking actions to their on-screen effects and stores them in a vector store.
- Guidance at run time. The agent retrieves relevant knowledge by visual-semantic similarity, ranks it, and turns it into dynamic guidance for its decisions.
GUI-explorer surpasses prior agents on AndroidWorld and SPA-Bench. The authors also release GUI-KRB, a benchmark exposing gaps in MLLMs' understanding of interfaces. The main appeal is that agents can adapt to new or updated apps with no parameter updates.
Key points
- Task success rates are 47.4% on AndroidWorld and 53.7% on SPA-Bench, built on GPT-4o. This is a 2.6–11.7% gain over SOTA agents such as M3A, Aria-UI and UGround.
- GUI-KRB contains 500 curated samples from 43 apps. Baseline MLLMs (Qwen2-VL, Qwen2.5-VL, Gemini 2.0 Flash, GPT-4o) show prior-knowledge error rates of 15.2–22.8%, while GUI-explorer reaches 6.8%.
- Knowledge mined in AndroidWorld still improves SPA-Bench results by 4.3% over no guidance, which suggests the knowledge transfers across environments.
- The knowledge ranker uses pairwise MLLM comparisons with merge sort. It accounts for 42.9% of run time but lowers the error rate by about 3%; the average cost is roughly 0.0015 USD per step.
- Limitations:
- Exploration anchors depend on Android manifest declarations, so the method does not yet apply directly to web or desktop.
- Each step takes about 66 seconds on average.
- The code is open-source at github.com/JiuTian-VL/GUI-explorer.
