Improving Retrieval Augmented Language Model with Self-Reasoning
Paper · 2024 · Yuan Xia, Jingbo Zhou, Zhenhui Shi et al.
Summary
Retrieval-augmented language models (RALMs) curb LLM hallucinations by adding external documents at inference time, but two weaknesses remain. Off-topic passages can mislead the model, and answers often lack citations that would let users verify them. Earlier fixes add separate NLI, summarization or critic models, which raises training cost and makes results depend on those helpers.
This Baidu paper (AAAI 2025) instead trains one LLM to write its own reasoning trace before answering, all in a single generation pass. The trace has three stages:
- the Relevance-Aware Process (RAP) decides whether the retrieved documents fit the question;
- the Evidence-Aware Selective Process (EAP) cites helpful documents, extracts key sentences and explains why they matter;
- the Trajectory Analysis Process (TAP) condenses this into a cited analysis followed by a short answer.
LLaMA2 is fine-tuned on only 2,000 generated, quality-filtered trajectories, using a gradual stage-wise masking schedule. On NQ, PopQA, ASQA and FEVER the model surpasses prior state of the art, including Self-RAG, and comes close to GPT-4. The approach offers more verifiable RAG at low data cost and without auxiliary modules.
Key points
- The evaluation covers four public datasets: NQ and PopQA (short-form QA), ASQA (long-form QA with citations) and FEVER (fact verification). Training uses just 2,000 samples, whereas Self-RAG needs tens of thousands for its critic and generator models.
- In the ablation with 13B models, removing EAP lowers average accuracy on NQ, PopQA and FEVER from 60.9 to 56.3. Dropping RAP hurts FEVER most, since the model answers NotEnoughInfo when it judges all documents irrelevant.
- Feeding the self-generated trajectories to plain 13B baselines raises FEVER accuracy from 53.4 to 79.2 for LLaMA2 and from 60.6 to 79.6 for Vicuna. NQ also improves, from 32.7 to 38.3 for LLaMA2.
- In robustness tests, shuffling document order barely matters. Replacing 50% of retrieved documents with passages from other questions hurts all models, but the self-reasoning model degrades least and stays ahead of Self-RAG and Vicuna.
- Human evaluation of citation recall and precision on ASQA ranks systems the same way as automatic NLI-based scoring. Inference latency is similar to Self-RAG.
