DOSE: Data Selection for Multi-Modal LLMs via Off-the-Shelf Models

Paper · 2026 · Biao Wu, Yiwu Zhong, Meng Fang et al.

Summary

Visual instruction tuning datasets are large and contain noisy, redundant, or poorly aligned image–text pairs. Many existing filtering methods also need extra training on the very data they are meant to screen. DOSE tests whether pretrained models that were never trained on the target data can choose training samples for a stronger vision–language model.

It scores each sample on two axes:

  • Text quality: an instruction-tuned LLM answers a yes/no prompt asking whether the text is informative, and the probability it assigns to accepting the sample becomes the score.
  • Image–text relevance: this is measured with CLIP-Score.

The two scores form a joint distribution. Instead of keeping only the top-ranked items, DOSE uses weighted random sampling that favours high scores while still covering lower-density regions, which preserves diversity.

On LLaVA-1.5-7B and 13B, a 20% subset keeps about 96% of full-data performance on general VQA. On math benchmarks it matches or beats full-data training. Everything runs at inference time, so selection is cheap and portable for labs with limited compute.

Key points

  • The candidate pool is the 665K-sample LLaVA Stage 2 instruction set. Evaluation covers TextVQA, GQA, POPE, MME, and multimodal math benchmarks.
  • With 20% of the data, DOSE reaches roughly 96% of full-data general VQA performance. The introduction says it also surpasses full data on math with 20%. The conclusion is more cautious: comparable at 20%, and better than full data with 40–80% subsets.
  • Sampling strategies compared:
    • Taking only top-scored samples can lose to random sampling at a 40% ratio, because it narrows task diversity.
    • The Gaussian-based weighted sampler ("Gas") consistently beats random selection.
  • In an ablation over 9 regions of the CLIP-Score × Text-Quality Score space, data where both scores are high works best. CLIP filtering gave little benefit on GQA, likely because its image–text alignment is already strong.
  • Limitations: only LLaVA-1.5 (7B/13B) and a small set of sampling ratios were tested.
