Charagram: Embedding Words and Sentences via Character n-grams
Paper · 2016 · John Wieting, Mohit Bansal, Kevin Gimpel et al.
Summary
This EMNLP 2016 paper by Wieting, Bansal, Gimpel and Livescu asks whether text representations built from characters need deep architectures. The authors propose CHARAGRAM. A word or sentence is turned into a vector of character n-gram counts, including boundary spaces. A single nonlinear layer then projects it into a dense space. In effect, this sums learned n-gram vectors and applies an activation, following the DSSM idea of Huang et al. (2013). For similarity, the models are trained on noisy paraphrase pairs from PPDB with a contrastive objective. They are compared against character-level LSTMs (charLSTM) and CNNs (charCNN) on three tasks: word similarity, sentence similarity, and English POS tagging. CHARAGRAM beats both neural baselines on the similarity tasks and sets a new best result on SimLex-999. It also surpasses PARAGRAM-PHRASE on sentence similarity. On tagging, all three models perform comparably, but CHARAGRAM converges fastest. The work matters because it shows that a very simple subword model is a strong, cheap baseline. Such a model also handles rare words, misspellings and morphology well.
Key points
- The model size is d + d|V|, where V is the chosen character n-gram vocabulary. The vocabulary is drawn from the lexical or phrasal part of PPDB XXL.
- Word similarity is evaluated on WS353 and SL999, plus the Stanford Rare Word dataset. Sentence similarity covers 22 datasets: all SemEval STS tasks from 2012 to 2015, the SemEval 2015 Twitter task, and SICK (2014).
- POS tagging uses the BiLSTM tagger setup of Ling et al. (2015a).
- Semantic tasks benefit far more from large n-gram vocabularies than tagging does. Even so, a few thousand n-grams already give strong similarity scores.
- In qualitative analysis, CHARAGRAM-PHRASE groups spelling variants, morphological forms and synonyms together, and partly captures negation (e.g., "not" bigrams), unlike PARAGRAM-PHRASE. Its n-gram vectors also reveal etymological links (die ≈ mort).
