Verifier-Free RL for LLMs via Intrinsic Gradient-Norm Reward

Paper · 2026 · Xuexiang Wen, Hang Yu, Linchao Zhu et al.

Summary

Reinforcement learning with verifiable rewards (RLVR) works well for LLM post-training, but it needs gold answers or task-specific checkers, which limits its use in new domains. Earlier verifier-free alternatives also have drawbacks: majority voting requires answers that can be extracted, and entropy-style intrinsic rewards tend to become unstable. The authors propose VIGOR, a reward computed only from the policy model. VIGOR draws multiple completions per prompt as a group and, for every completion, calculates the ℓ2 norm of the gradient of the teacher-forced token-averaged NLL. Completions with smaller norms receive higher reward, on the idea that they fit the current policy better. Two fixes make this usable inside GRPO:

  • a √T rescaling removes the tendency of the norm to shrink as completions get longer;
  • within-group rank shaping keeps reward scales comparable across prompts.

Qwen2.5 base models were post-trained separately on math and on code data. Trained on MATH, VIGOR beats a leading RLIF baseline on math benchmarks, transfers to code, and trains more stably. This makes it a candidate for RL in settings without verifiers.

Key points

  • Main result: on Qwen2.5-7B-Base trained on MATH, VIGOR beats the state-of-the-art RLIF baseline by +3.31% average math accuracy and +1.91% average code accuracy.
  • Length correction: raw gradient norms fall from about 180 to about 90 as completions grow from ~250 to ~1000 tokens. After √T scaling, the values stay near 2.85×10³ across all length bins.
  • Link to correctness: with G=8 completions per prompt at training step 10, the best-ranked completion by gradient norm reaches 70.50% accuracy versus 52.70% for the worst. The gap shrinks to 8.9 points at step 20, but the ordering stays monotonic.
  • Ablations:
    • Without √T, Qwen2.5-3B learns to inflate output length and collapses to near-zero accuracy on GSM8K/AMC.
    • Without rank shaping, the 7B model loses 8.90% on MMLU-Pro.
    • VIGOR's outputs are much shorter than those of INTUITOR, whose completions grow steadily longer during training.
  • Limitations:
    • Per-sample gradient computation adds overhead; an LM-head-only variant largely reduces this cost.
    • Experiments cover verifiable reasoning tasks only, so it is unclear how well VIGOR works for open-ended generation such as long-form writing or dialogue.
