SOLAR-RL: Semi-Online Long-horizon Assignment Reinforcement Learning

Paper · 2026 · Jichao Wang, Liuyang Bian, Yufeng Zhou et al.

Summary

The paper targets long-horizon navigation for GUI agents built on MLLMs. Offline RL on step-level data ignores trajectory-wide outcomes, while online RL is costly and unstable on workflows of 30+ steps. Both suffer from the credit assignment problem. SOLAR-RL takes a semi-online route: it simulates online feedback using only static demonstrations. At each step the policy produces N parallel rollouts, and candidates sharing an index are chained into reconstructed trajectories. Per-step validity checks then locate the first step where execution breaks down. Only the correct prefix before that point earns positive reward, and invalid steps are penalized. Target-aligned shaping makes the total return match trajectory-level quality. Training follows a two-stage curriculum, and the method is evaluated on Android Control, GUI-Odyssey and Android World. Compared with GRPO, SOLAR-RL avoids policy collapse and reaches higher success rates on long and very long tasks. This matters because it yields dense, stable training signals with no live-environment interaction cost.

Key points

  • Two components: Offline Trajectory Reconstruction (N parallel rollouts per step) and Trajectory-Aware Reward Shaping (failure-point detection, prefix credit assignment, target-aligned shaping). The task is formulated as a POMDP.
  • Training stability: the GRPO baseline collapses after roughly 600 training steps. SOLAR-RL improves monotonically to a mean action reward of about 0.75. On the error-correcting PressBack primitive, it exceeds 0.8 precision, while GRPO oscillates.
  • High-Level split, success rate:
    • Long horizon: about 0.70 for SOLAR-RL vs. about 0.66–0.67 for 2-stage GRPO.
    • Super Long horizon: about 0.66 vs. about 0.58–0.60.
  • Limitations: results are bounded by offline dataset coverage. Validity currently comes from ground-truth annotations plus heuristics (coordinate distance, text matching, action type), though learned verifiers or PRMs could replace them. Experiments cover only Android.
  • Venue: Findings of ACL 2026. The work comes mainly from vivo AI Lab and Zhejiang Lab.
