Soft Orthogonal Low-Rank Adaptation for Knowledge Sharing in Large Language Model Continual Learning

Paper · 2026 · Yitong Wang, Xue Han, WenChun Gao et al.

Summary

The paper addresses continual learning (CL) for large language models. Full retraining is too costly at this scale, and most existing CL methods focus only on preventing catastrophic forgetting, without exploiting knowledge that tasks could share. The authors first observe that better-performing CL models produce output distributions that are more similar across tasks. This suggests that inter-task connections help.

They propose ASO-LoRA, which works in two steps:

  • Separate adapters: each new task gets its own LoRA block while the base model and earlier blocks stay frozen. Inference does not require task labels.
  • Soft orthogonality: instead of forcing a new task's subspace to be strictly orthogonal to earlier ones, as O-LoRA does, ASO-LoRA weakens this regularization in proportion to task similarity. Similarity is measured with attribution scores from knowledge-neuron analysis, so related tasks can partly share parameter directions.

Experiments on T5-large and LLaMA2-7B over standard and longer CL benchmarks show ASO-LoRA generally beating strong baselines. It improves forward transfer and, over long task sequences, reduces forgetting. The method is presented as a plug-in for Transformer LLMs.

Key points

  • The benchmark pool contains 15 tasks. These are the sentiment datasets Amazon, Yelp, IMDB and SST-2, the topic datasets AG News, DBpedia and Yahoo, and the remaining tasks RTE, MNLI, CB, QQP, COPA, WiC, BoolQA and MultiRC. They are evaluated under task orderings Order1–3 (standard benchmarks) and Order4–5 (longer benchmarks).
  • Decoder-only results: ASO-LoRA averages 0.9% above O-LoRA on standard benchmarks.
  • Per-task results on T5:
    • In Order3, ASO-LoRA scores 21.8% higher than O-LoRA on Amazon.
    • In Order2, its average accuracy falls below O-LoRA's, although it wins on more individual tasks.
  • Learned task similarity: the similarity weights behave plausibly. CB correlates strongly with MNLI (both are NLI tasks), and RTE correlates with BoolQA (both draw on Wikipedia).
  • Evaluation and limitations: forgetting and transfer are measured with FM and FWT. The authors acknowledge degradation on long task sequences and differences between architectures. Code: github.com/736619821/ASO-LORA.
