FusionFlow: Enabling Deep Structural Exploration for Automated Agentic Workflow Generation
Paper · 2026 · Xiang Wang, Zongtao Yang, Zhuojian Hong et al.
Summary
Automated generators of agentic workflows, such as ADAS and AFlow, usually improve one evolving workflow through small local edits or tree search. With a limited optimization budget, this approach caps how many useful structural changes can build up along a search path, which the authors call structural depth. Workflows that need deep compositional structure therefore stay out of reach.
FusionFlow addresses this with a Fusion Operator. It combines strong components from several workflows that evolved separately, so the search can jump to deeper structures rather than advancing one edit at a time. Three further elements support fusion:
- an Optimization Operator for local refinement;
- a Differentiation Operator that produces specialized variants for task sub-domains, motivated by the clear category structure of MATH;
- a Dynamic Scheduling Algorithm that chooses which operator to apply next.
Across six reasoning and coding benchmarks, FusionFlow consistently beats existing workflow generators. Ablations show fusion is the main source of the improvement. This suggests that recombining workflows is a practical way past the depth ceiling of incremental search.
Key points
- The six benchmarks are DROP, GSM8K, HotpotQA, HumanEval, MBPP and MATH. Each search run has a 20-round budget, and the final workflow is selected by best validation accuracy.
- In the MATH ablation, adding fusion alone raises accuracy by about 8.4 points over optimization-only search, which behaves like AFlow. Combining differentiation with fusion gives the best result.
- On the harder benchmarks (HotpotQA, MBPP, MATH), AFlow stalls early, while FusionFlow keeps improving and reaches validation gains of roughly 5–8 points. On the easier GSM8K and HumanEval, both methods plateau quickly.
- Gains over Direct IO and AFlow hold with four executor models: GPT-4o-mini, GPT-4o, Qwen-2.5-14b and Llama-3-8b. This points to model-agnostic benefits.
- Workflows are represented as code-based directed graphs of LLM nodes. The scheduler is modeled as a non-stationary Markov process that balances exploitation and exploration.
