POSITION BIAS MITIGATES POSITION BIAS: Mitigate Position Bias Through Inter-Position Knowledge Distillation
Paper · 2025 · Yifei Wang, Feng Xiong, Yong Wang et al.
Summary
Long-context LLMs use information unevenly: content near the beginning or end of the input is used reliably, while material placed in the middle is often missed. This positional bias (PB) hurts retrieval-augmented QA and multi-document reasoning. Earlier fixes either alter architecture, such as positional encodings, attention or causal masks, which leaves sizeable gaps, or depend on costly synthetic training data. The authors propose Pos2Distill, which turns PB against itself. A model's stronger answers when the key document sits at a favorable position serve as supervision for its weaker answers when the same document appears elsewhere.
The analysis finds that PB behaves differently by task type. In retrieval it shows up as "token-shifting," where a single wrong token at a decisive point derails the answer. In reasoning it shows up as "thought-shifting," where the chain-of-thought trajectory drifts. Two variants address these cases:
- Pos2Distill-R1 uses KL-divergence distillation for token-level correction.
- Pos2Distill-R2 distills high-quality CoT responses.
Both variants make accuracy more uniform across positions and raise it overall. They need little data and transfer to each other's tasks. This makes PB mitigation cheap and practical.
Key points
- With only 250 training instances, Pos2Distill improves Mistral-7B-v0.3 on NQ by 6.7%.
- On Qwen1.5-7B, Pos2Distill-R1 raises NQ from 62.5 to 74.3. Pos2Distill-R2 raises MusiQue from 41.8 to 48.9 and HotpotQA from 66.7 to 72.3.
- Each variant also helps on the other task family. R1 adds 3.3 points on MusiQue, and R2 adds 2.8 points on WebQ.
- The method scales to larger models (30-document setting). On Qwen2.5-32B, R1 cuts the retrieval position gap from 7.2 to 2.6, and R2 cuts the reasoning gap from 9.0 to 4.9.
- Code is released at github.com/AMAP-ML/Pos2Distill (AMAP, Alibaba Group, and CASIA).
