Let's Reason Formally: Natural-Formal Hybrid Reasoning Enhances LLM's Math Capability
Paper · 2025 · Ruida Wang, Yuxin Li, Yi R. Fung et al.
Summary
Reinforcement learning on base models has improved LLM math reasoning, but it mostly sharpens skills the model already has. Formal theorem-proving systems such as Lean offer complementary knowledge, yet they are hard to apply to ordinary math questions. Formal tasks are closed theorems with a fixed goal, while natural-language (NL) problems usually ask for an unknown answer. Formal provers also tend to output code rather than a direct answer. The authors propose NL-FL HybridReasoning (NFL-HR), an end-to-end pipeline that applies a formal-language (FL) prover to NL problems. A general LLM first rewrites each question-answering problem as a statement that a solution exists. An autoformalizer then turns that statement into a Lean4 theorem. The prover receives the original question and the formal statement together, solving both in a single Long CoT. Another LLM finally extracts the implied NL answer from this output. On MATH-500 and AMC, NFL-HR outperforms a pure-NL Qwen3-8B baseline. It also cracks problems the baseline misses even with many more attempts, showing that formal knowledge can extend NL math ability.
Key points
- The framework has three stages: NL-FL Problem Alignment (QA to existence problem, then to a Lean4 statement), FL Reasoner Solving with the Mixed Problem Input technique, and LLM-based Answer Extraction.
- Accuracy reaches 89.80% on MATH-500 and 84.34% on AMC, beating the Qwen3-8B NL baseline by 4.60 and 4.82 points.
- NFL-HR improves over the baseline in every subject category of MATH-500.
- Recasting questions as existence theorems avoids the older practice of placing the known answer inside the formal statement. That practice is useless when the answer is unknown, and LLM-guessed answers would mislead the prover.
- The authors list two limitations: Lean's verifiability is not yet used to correct NL reasoning, and the NL-FL format gap remains. They suggest blank-filling formal problems as future work.
