Language Mixing in Reasoning Language Models: Patterns, Impact, and Internal Causes
Paper · 2025 · Mingyang Wang, Lukas Lange, Heike Adel et al.
Summary
Reasoning language models (RLMs) such as DeepSeek-R1 sometimes switch into other languages within their chain of thought. Earlier reports disagreed on whether this switching helps or hurts accuracy. The authors present the first systematic study of the behaviour, asking when it occurs, how it affects results and what drives it internally. They test DeepSeek-R1 and its Qwen- and Llama-based distilled versions, plus QwQ-32B, Qwen3 and Gemini 2.0 Flash Thinking. The benchmarks are the Knights-and-Knaves (K&K) logic puzzles and multilingual MMLU. Mixing is measured as the entropy of the language distribution inside reasoning traces. It is strongest for prompts outside English and Chinese, grows as puzzles get harder, and is highest in STEM subjects. A script-control technique based on constrained decoding shows that forcing reasoning into Latin or Han script can substantially raise accuracy for inputs written in other scripts. A script-level Logit Lens analysis finds that hidden states match the script makeup of the visible reasoning and consistently lean toward Latin. For users of languages other than English and Chinese, the choice of reasoning language is therefore a practical lever for both quality and interpretability.
Key points
- Coverage: 15 input languages, 7 difficulty levels (K&K puzzles with 2–8 characters) and 18 m-MMLU subjects grouped into Humanities, Social Science, STEM and Other.
- K&K translation: The original English K&K set was translated with gpt-4o-mini into Arabic, French, Hindi, Japanese and Chinese, giving six languages in total.
- Script control: Restricting reasoning to Latin or Han script via constrained decoding improved accuracy by up to 110% in some settings. The gains were especially clear for Arabic, Hindi and Japanese inputs.
- Effect of distillation: For inputs other than English or Chinese, distilled models showed higher mixing entropy than their backbones. The pairs compared were DeepSeek-R1-Distill-Qwen-14B/32B against Qwen2.5-14B/32B, and DeepSeek-R1-Distill-Llama-70B against Llama3.3-70B-Instruct. DeepSeek-R1 itself still mixes languages despite its language consistency reward.
- Internal causes: Script-level Logit Lens shows that internal representations mirror the script composition of the reasoning traces, with a steady Latin bias. The authors release their data and code.
