mDPO: Conditional Preference Optimization for Multimodal Large Language Models

Paper · 2024 · Fei Wang, Wenxuan Zhou, James Y. Huang et al.

Summary

Applying DPO to multimodal LLMs often yields inconsistent gains, and earlier work mostly blamed the quality of preference data. The authors ran a controlled test. They trained Bunny-v1.0-3B on Silkie preference pairs with every image removed and found that it scored about as well on MMHalBench as the version trained with images. They call this the unconditional preference problem: the optimization learns text-level preferences and largely ignores the visual input.

Their method, mDPO, adds two terms to the standard objective:

  • Conditional term: the chosen answer stays fixed while the real image is contrasted with a degraded copy, so only visual content can explain the preference.
  • Anchor term: the chosen response's reward must stay above a threshold. This stops the likelihood of good answers from shrinking, which purely relative objectives allow.

Across Bunny-v1.0-3B and LLaVA-v1.5-7B, with automatic and human evaluation on three hallucination benchmarks, mDPO consistently beats standard DPO. The work shows that multimodal alignment failures can stem from the training objective itself, not only from the data.

Key points

  • Diagnostic experiment: Bunny-v1.0-3B was trained on 10K preference instances from the LLaVA-Instruct subset of Silkie. The "DPO (No Image)" variant matched or slightly exceeded regular DPO on MMHalBench.
  • Rejected images for the conditional objective are made by randomly cropping the original so that under 20% of it remains. This was the best-performing strategy among those the authors tested.
  • Evaluation covered MMHalBench, Object HalBench and AMBER. The authors report the strongest 3B multimodal LLM for hallucination reduction.
  • In the fine-grained MMHalBench analysis (scores up to six), mDPO wins on six of eight question types. The largest gains come on adversarial questions that contain false premises about the image.
  • Stated limitations: only two models were tested, combinations with other DPO improvements are unexplored, and the benchmarks cover a narrow range of tasks.
