Halu-J: Critique-Based Hallucination Judge
Paper · 2024 · Binjie Wang, Steffi Chern, Ethan Chern et al.
Summary
LLMs often produce factually wrong statements. Retrieval-based detectors usually reduce the check to a bare label. They give little justification, can be thrown off by off-topic retrieved passages, and weigh all evidence equally. Halu-J addresses this with an open judge model of 7 billion parameters. Given a claim and several evidence passages, it sorts the passages by relevance, reorders them, and examines each one. It then combines its findings into a written critique and a True/False/Neutral label. To train and test this behaviour, the authors built ME-FEVER on top of FEVER. GPT-4-Turbo adds three kinds of paragraphs to each original passage: unrelated ones, on-topic but uninformative ones, and deliberately misleading ones. The model is further tuned with DPO preference learning. With multiple evidence passages, Halu-J beats every baseline, including GPT-4o, on label accuracy and evidence matching. Its critique quality comes close to GPT-4o's. The work shows that a small open model can deliver explainable fact checking that holds up against noisy retrieval. ME-FEVER also offers a harder benchmark than single-evidence NLI sets.
Key points
- ME-FEVER: 3,901 instances (2,663 train / 1,238 test). Each claim comes with 2 completely irrelevant, 4 partially irrelevant and 1–3 highly related (partly misleading) passages. The data was generated with GPT-4-Turbo, with GPT-3.5-Turbo used to expand paragraphs.
- Multiple-evidence results (Halu-J vs GPT-4o):
- Accuracy: 0.91 vs 0.83
- Evidence-matching rate: 68.11% vs 61.43%
- Critique score: 83.90 vs 85.85 (second-best overall)
- DPO contribution: DPO gives small gains on every metric.
- ME-FEVER accuracy: 0.90 → 0.91
- ANLI accuracy (single evidence): 0.69 → 0.70
- Critique score and evidence-matching rate also improve.
- Critique scoring: Critiques were scored by GPT-4-Turbo. On 100 annotated ME-FEVER items, this scorer correlates with human ratings at Pearson 0.70.
- Baselines: GPT-3.5-Turbo, GPT-4o, Mistral-7B-Instruct-v0.2, Llama-2-13b-Chat, Llama-3-8B-Instruct and Qwen1.5-7B-Chat. Imposing an output format template lowered accuracy for most of these models. Code and data are available at github.com/GAIR-NLP/factool.
