“Kelly is a Warm Person, Joseph is a Role Model”: Gender Biases in LLM-Generated Reference Letters
Paper · 2023 · Yixin Wan, George Pu, Jiao Sun et al.
Summary
The paper asks whether large language models carry gender stereotypes into a sensitive real-world task: drafting recommendation letters that users may submit with little or no editing. The authors draw on social science work showing that biased wording in professional letters hurts women's career prospects. They build a testbed with prompt datasets and metrics and apply it to ChatGPT and Alpaca in two settings. In Context-Less Generation (CLG), the prompt contains only minimal gendered details. In Context-Based Generation (CBG), the model also receives a biography of the candidate.
Bias is measured along two axes. The first is lexical content, meaning which words are most salient. The second is language style, covering formality, positivity and agency. The authors also introduce "hallucination bias": stereotypes that grow stronger in text the model invents beyond the given input.
Both models show significant gender bias. Women are typically described as warm and communal, while men are described as agentic leaders. Invented passages make this gap worse. The study argues that LLM-written professional documents need careful review before use.
Key points
- Two evaluation scenarios, CLG and CBG, are tested on ChatGPT and Alpaca. Code and data are released at github.com/uclanlp/biases-llm-reference-letters.
- The style dimensions come from social science findings on professionalism, excellency and agency. They are operationalised as formality, positivity and agentic versus communal language.
- Hallucinated content is detected with a Context-Sentence NLI setup. It uses an off-the-shelf RoBERTa-Large NLI model fine-tuned on SNLI, MNLI, FEVER-NLI and ANLI (R1–R3).
- ChatGPT's hallucinated sentences are significantly more formal (p≈1.3e-14) and more positive (p≈8.3e-09) for men. They are significantly less agentic for women (p≈3.1e-12).
- Alpaca's hallucinations are less formal for women (p≈4.2e-180) and more positive for men (p≈6.1e-11). They are also less agentic for women (p≈4.3e-10).
