PagedEviction: Structured Block-wise KV Cache Pruning for Efficient Large Language Model Inference
Paper · 2026 · Krishna Teja Chitty-Venkata, Jie Ye, Siddhisanket Raskar et al.
Summary
The size of the KV cache scales in direct proportion to sequence length, and it quickly becomes the main GPU memory bottleneck in long-context LLM inference. Most pruning methods have two problems in production serving systems such as vLLM. First, they need attention scores, which FlashAttention-style kernels never expose. Second, they remove individual tokens scattered across memory pages, which reintroduces the fragmentation that PagedAttention was designed to prevent.
The authors propose PagedEviction, a pruning scheme that respects vLLM's paged layout. It estimates importance with a proxy computed only from the cached Key and Value tensors, so it needs no stored attention weights and no changes to the CUDA kernels. During prefill, it drops low-importance tokens before the sequence is split into blocks. During decoding, it scores whole blocks and evicts one complete block each time the newest block fills up, rather than evicting at every step.
Tests on LongBench with three Llama models show better accuracy than other attention-free baselines under tight budgets, with higher throughput and lower latency. This makes the approach a practical fit for real serving stacks.
Key points
- Models evaluated: Llama-3.2-1B-Instruct, Llama-3.2-3B-Instruct and Llama-3.1-8B-Instruct, on LongBench tasks including GovReport and MultiNews. Baselines were Full Cache, StreamingLLM, KeyDiff and Inverse Key L2-Norm.
- GovReport, Llama-3.2-1B, 1024-token budget: PagedEviction reached 24.5 ROUGE, versus 21.0 for StreamingLLM and 21.2 for KeyDiff.
- MultiNews, Llama-3.2-3B: it scored 23.6 ROUGE, 1.1 points above Inverse Key L2-Norm. At a 1024-token budget it stays within about 0.5–1.5 ROUGE of the full cache.
- Throughput on Llama-1B at a 1024 budget was about 3020 tokens/sec, compared with roughly 2200 for Full Cache. In the page-size ablation (page sizes 8, 16 and 32), throughput gains reached up to 3.1× over Full Cache. Time per output token fell by roughly 12%, 10% and 11% for the 1B, 3B and 8B models.
- Limitation: the L2-norm scoring, block eviction and block-table updates are written in Python, so the speedups are not yet optimal. A custom kernel is proposed as future work.
