Merge and Conquer: Instructing Multilingual Models by Adding Target Language Weights
Summary
Instruction-tuned LLMs still perform poorly in low-resource languages. Adapting them usually requires costly continual pre-training and scarce target-language instruction data, and this work must be redone whenever a better instructed model appears. The authors test whether model merging can avoid this. They train a language-specific base model once, then combine its weights with an off-the-shelf instructed model, so no target-language instructions are needed. Base models were continually pre-trained for Basque, Galician, Catalan and Spanish on Llama 3.1 and Qwen3 backbones. They then compared several merging methods, including Task Arithmetic, linear and nearswap, along with their hyperparameters. Evaluation covered multiple-choice benchmarks, machine translation (BLEU) and instruction following via IFEval, which the authors extended to Basque and Galician. Merged models gained substantial target-language ability while keeping instruction following. For Basque, they came close to an expensive jointly trained model. Merging several language models into one also produced a usable multilingual model. This matters for communities with little compute, because adapting each new instructed release costs only a cheap merge.
Key points
- Each language corpus was capped at about 3.5B tokens, plus a small English set (0.5M FineWeb documents, about 0.3B tokens) to prevent catastrophic forgetting. Sources were Latxa (Basque), CorpusNÓS (Galician) and CulturaX (Spanish and Catalan), with the CulturaX data filtered using Dolma's Gopher and C4 heuristics.
- On Basque benchmarks, Llama 3.1 8B Instruct averages 49.29. The Task Arithmetic merge-EU model reaches 61.48, nearly matching the joint-EU model at 61.75. For Qwen3 14B, the Basque average rises from 52.09 to 65.19.
- Translation into Basque roughly doubles in BLEU: from 7.18 to 13.62 for Llama 3.1 8B, and from 3.51 to 12.65 for Qwen3 8B.
- Combined multi-language merges ("merge-multi") improve on the instructed baselines across languages at once. Examples are Llama 3.1 8B at 53.31 on Basque and Qwen3 14B at 56.37.
- The authors released the base and merged models for all four languages, plus Basque IFEval, in the HiTZ "merge-and-conquer" collection on Hugging Face.
