Measuring Chain of Thought Faithfulness by Unlearning Reasoning Steps
Paper · 2025 · Martin Tutek, Fateme Hashemi Chaleshtori, Ana Marasovic et al.
Summary
The paper asks whether the step-by-step reasoning (chain of thought, CoT) that language models produce reflects the knowledge the model actually relies on. Earlier tests edit or remove CoT steps from the prompt. The authors argue this only measures contextual faithfulness, or self-consistency, because the model can still recover the deleted information from its weights.
They propose the Parametric Faithfulness Framework (PFF), which intervenes on parameters instead of context. Their instance, FUR (Faithfulness by Unlearning Reasoning steps), works in four moves:
- generate a CoT;
- split it into steps;
- unlearn each step separately from the model using NPO combined with a KL retain term;
- ask the modified model for a direct answer, without a CoT.
Controls check that unlearning hit the target step, left unrelated knowledge intact, and preserved general abilities. If removing a step shifts the prediction, that step faithfully explains the answer.
Across four LMs and five multi-hop multiple-choice QA datasets, FUR often flips predictions by erasing key steps. The paper argues that trustworthy faithfulness claims require access to model parameters.
Key points
- Two metrics: FF-HARD judges whether a whole CoT is faithful, while FF-SOFT ranks individual steps by their influence on the prediction.
- Deeper effect of unlearning: After unlearning, models produce new CoTs that argue for a different answer, which suggests the erased steps were genuinely used. Human and LLM-as-a-judge annotations support this analysis.
- Faithful is not the same as plausible: In a human study, the steps FUR flagged as important were not judged plausible. The authors see a need for alignment that targets both properties.
- Cheaper variant: LoRA (ranks 8, 32, 128) on the FF2 matrix of LLaMA 3B and 8B, tested on 30 instances from Sports and StrategyQA, is a workable substitute for full fine-tuning. For LLaMA-3B, all ranks changed predictions on exactly the same instances.
- Limitations:
- It covers only cases where CoT and no-CoT answers agree.
- It depends on imperfect unlearning methods, so precision is high but recall is not guaranteed.
- It cannot be used on closed API models.
- Experiments are limited to English MCQA.
- Code is available at github.com/technion-cs-nlp/parametric-faithfulness.
