Dependency Graph Enhanced Dual-transformer Structure for Aspect-based Sentiment Classification
Paper · 2020 · Hao Tang, Donghong Ji, Chenliang Li et al.
Summary
The paper addresses aspect-based sentiment classification: deciding the polarity a sentence expresses toward a particular aspect, such as positive about "battery life" but negative about "memory" in the same review. Earlier GCN models built on dependency trees gained little, because parser errors and informal text make the trees noisy, and graph propagation handles distant or unconnected words poorly. The authors propose DGEDT, which runs two parallel encoders on BiLSTM or BERT contextual states. One is a standard Transformer producing flat representations. The other is a Transformer-like bidirectional GCN (BiGCN) that operates over an aspect-modified dependency graph. The two branches repeatedly exchange information through a mutual BiAffine step, so syntax can correct self-attention and self-attention can compensate for faulty parses. Multi-word aspect mentions are merged into single units, and representations from repeated mentions are max-pooled before an aspect-aware attention classifier. On five benchmarks (Twitter, Lap14, Rest14, Rest15, Rest16), DGEDT reportedly beats prior state-of-the-art systems. This shows that dependency structure is most useful as a complementary signal rather than the sole backbone.
Key points
- The authors interpret GCN as a restricted Transformer: it uses one attention head and replaces learned attention weights with a fixed, normalized adjacency matrix. This view motivates pairing the two in a "dual-transformer" design.
- Accuracy of the BiLSTM-based DGEDT is 74.8 (Twitter), 76.8 (Lap14), 83.9 (Rest14), 82.1 (Rest15) and 90.8 (Rest16).
- In the ablation, dropping the mutual BiAffine interaction causes the largest loss (e.g., Rest14 falls to 82.4, Twitter to 73.0). Replacing BiGCN with a plain GCN, removing multi-aspect aggregation, or removing masking each cause smaller declines.
- On Lap14 and Rest14, three interaction iterations work best. Fewer iterations leave dependency information under-propagated, while more lead to overfitting.
- Case studies show the model leaning on syntax when attention picks a misleading word, as in "less than accommodating". They also show it falling back on flat attention when the parse is misleading, as in "little place … wonderfully warm".
