Steering into New Embedding Spaces: Analyzing Cross-Lingual Alignment Induced by Model Interventions in Multilingual Language Models
Paper · 2025 · Anirudh Sundar, Sinead Williamson, Katherine Metcalf et al.
Summary
Multilingual LLMs perform better on cross-lingual tasks when their representations of different languages are well aligned. Achieving this usually requires costly fine-tuning on parallel data, which is scarce for many languages. The authors ask whether a cheap activation-steering method, "finding experts", improves alignment as a side effect.
For five target languages (English, German, French, Spanish, Japanese), they use Flores200 sentences to locate MLP neurons whose activations best separate the target language from the others, ranked by AUROC. They then fix the top-k of these neurons to their mean activation. They examine embedding spaces before and after this intervention in Aya-8b, PolyLM-13b and Bloom-7b.
Steering toward a single language pulls embeddings of many languages closer together while largely preserving within-language similarity. This yields up to a twofold gain in top-1 cross-lingual retrieval accuracy, although perplexity rises. Intervening on randomly chosen neurons does not produce these gains. The work points to a data-light route to better cross-lingual alignment, which is useful for lower-resource settings.
Key points
- Models were chosen because their pre-training language composition is documented: Aya-8b (instruction-tuned), PolyLM-13b (chat) and Bloom-7b (base). Mistral, Llama and Gemma were excluded.
- Experts come from the Flores200 dev split. The target language serves as positives, and the other four languages plus Chinese serve as negatives. Mean expert AUROC was 0.97 for Aya-8b, 0.99 for Bloom-7b and 0.83 for PolyLM-13b.
- The value of k was swept from 100 to 5000 experts. Each setting was scored with lang-id on 2048 free generations and with perplexity on a 10M-token Wikipedia corpus. Bloom-7b could be steered into German and Japanese despite these languages not being listed in its training data.
- The best result was up to 2x top-1 cross-lingual retrieval accuracy, and alignment correlated significantly with retrieval performance. The random-neuron control mostly reduced or left accuracy unchanged.
- PolyLM-13b was a consistent outlier. Expert overlap does not explain this, since the top 2000 experts identified for each language shared almost no neurons with those of the other languages. The authors suspect differences in training data.
