Shuttle Between Symbolic Instructions and Neural Parameters of Large Language Models

Summary
Prompts and fine-tuned weights are usually treated as separate tools for steering an LLM. The authors argue that both are compact encodings of the same task data, so each should be predictable from the other. Their framework, SHIP, learns this translation in both directions. It has three parts:
- a trainable encoder that turns an instruction into a Gaussian latent;
- a decoder that regenerates the instruction from that latent;
- a frozen task LLM that uses the latent as adapter weights (parameter deltas, soft prompts or LoRA).
Training combines a VAE reconstruction loss, a VIB-style task loss and KL regularization. In the instruction-to-parameters direction, SHIP works as a hyper-network: it adapts the model to a task with no gradient updates. In the reverse direction, parameters are fitted on few-shot examples and then decoded into a readable instruction, which shows what the model actually learned. On Super-Natural Instructions (SNI) and P3, deduction is on par with baselines, while induction clearly beats earlier methods such as ItD. This suggests that trained weights hold recoverable task meaning, which is useful for both interpretability and fast adaptation.
Key points
- Setup: the backbone is Qwen-2.5-7b-Instruct, used as the frozen task LLM. The encoder and decoder are LoRA modules of rank 128 and 1. The latent z has 17,920 dimensions and is injected by default as randomly indexed parameter deltas. Loss weights are 1.0 / 1.0 / 1e-3.
- Induction results: SHIP outperforms ItD by more than 15% on seen tasks and about 10% on unseen tasks. Combining both mappings also improves inductive reasoning.
- Cycle-consistency: adding an explicit cycle-consistency loss (weight 10) gives similar overall results, but it appears to help induction on unseen tasks.
- Human evaluation (100 SHIP-pretrain induction cases): humans judged 45% of decoded instructions equivalent to the ground truth, versus 38% for GPT-4o-mini, with 93% agreement between them. For SHIP-domain, GPT-4o-mini judged 89.8% equivalent (184/205).
- Additional analyses: the paper studies fusion methods, latent dimensionality, textual conditioning and pre-training for cross-task generalization. Its stated limitations are that it covers only PEFT adapters and only instructions as the symbolic form.
