Markovian Linguistic-Temporal Bridge: Unlocking the Potential of LLMs for Time Series Forecasting
Paper · 2026 · Siming Sun, Kai Zhang, Xuejun Jiang et al.
Summary
Most current methods that adapt pretrained LLMs to time series forecasting align each time-series patch with text embeddings independently. The resulting input reads like scattered keywords, so the LLM ends up as a feature extractor rather than a sequence reasoner. The authors propose MGSAA (Markovian-Guided Structure-Aware Alignment) to fix this by aligning the two modalities at the level of whole sequences.
As an offline step, they cluster context-aware token representations from the LLM's intermediate layers, using text from a "dynamical subspace" of smooth, causally ordered prompts. They then distill these clusters into a Hidden Markov Model whose transition matrix serves as a structural prior. Time-series patches are decoded into these latent states, and each patch attends only to text prototypes linked to its assigned state. The resulting token sequence follows transition patterns the frozen LLM already models.
The authors report state-of-the-art results in long-term, short-term, few-shot and zero-shot forecasting, with lower compute than rival LLM-based methods. This suggests that structure-aware alignment is a cheaper and more interpretable way to use LLMs for forecasting.
Key points
- Two problems addressed: "model degradation" (the LLM reduced to an encoder) and "input misalignment" (pointwise retrieval breaks semantic continuity). The authors argue that fixing the input is a precondition for fixing the model.
- Pipeline:
- channel-independent patching with instance normalization;
- structure-constrained state decoding;
- state-conditioned cross-attention to the top-k tokens of each state;
- a frozen LLM (6-layer GPT-2) plus a prediction head.
- Hyperparameters:
- Sensitivity was tested on ETTh1 and Weather.
- N = 32 latent states was sufficient; 64 gave only marginal gains.
- k = 50 prototype tokens worked best; k = 1000 added noise.
- Efficiency (ETTh1, single NVIDIA L40s GPU, batch size 32):
| Model | Total params | Trainable params | Training time per step | Inference time per batch |
|---|---|---|---|---|
| MGSAA | 87.20M | 4.06M | 0.014 s | 0.004 s |
| Time-LLM | 148.89M | 52.80M | 0.058 s | 0.024 s |
| FSCA | 89.28M | 8.17M | 0.070 s | 0.026 s |
- Limitations and code: N is fixed in advance, and the method depends on hand-made prompt templates. Code is available at github.com/sunzju/MGSAA.
