MAGNET: Towards Adaptive GUI Agents with Memory-Driven Knowledge Evolution

Paper · 2026 · Libo Sun, Jiwen Zhang, Siyuan Wang et al.

Summary

Mobile GUI agents built on multimodal LLMs tend to break when apps are updated. Icons get redesigned ("appearance drift") and navigation paths get reorganized ("workflow drift"), so models trained on older interface snapshots stop working. The authors observe that what an element does, and what a user wants to achieve, usually survive such updates. MAGNET builds on that observation with a planner–actor agent that has two memories:

  • Procedural memory stores abstract workflow templates, so the planner can break requests into subtasks.
  • Stationary memory pairs UI element image patches with function descriptions, so the actor can locate targets even after a visual redesign.

Both memories are populated by automatic pipelines and keep evolving: new knowledge from successful runs is added, and entries are ranked by how often and how recently they are used. The paper also releases UI-40K, a multimodal dataset of element–function pairs. MAGNET was tested online in AndroidWorld and on three offline benchmarks. It beats zero-shot memory-augmented baselines, stays competitive with specialized models, and holds up under distribution shift. This suggests that exploiting stable semantics behind changing interfaces is a workable route to agents that survive app updates.

Key points

  • UI-40K contains 41,009 entries of the form screen–action–description–next screen, covering 20,618 unique functional intents. It was derived from AITZ, GUI-Odyssey and Amex, and quality was checked both automatically with MLLMs and by hand.
  • Stationary memory construction:
    • click triplets are parsed with OmniParserV2;
    • function descriptions are generated by Qwen2.5-VL-32B;
    • duplicate entries are filtered out.
  • Procedural memory construction:
    • instructions are embedded with MiniCPM-Embedding;
    • instructions are grouped by finding maximal cliques in a similarity graph;
    • each group is abstracted into a template with placeholders such as [AppName].
  • Plugging memory into fixed-format grounding models: retrieved patches are template-matched against the screenshot, and the match is drawn as a bounding-box hint. This avoids changing the model's input format.
  • Stated limitations:
    • performance depends on having successful trajectories, which hurts cold starts in new domains;
    • stale memory entries can mislead the actor when an element's appearance and function change together.
